温度予測システムは、連続する複数のゾーンを有する連続加熱炉における被加熱材の温度である被加熱材温度を予測する温度予測システムであって、操業データを収集し、総括熱吸収率を所定範囲毎の操業データに関連付けて保存する収集部と、各ゾーンの機械学習モデルを生成する学習部と、各ゾーンの総括熱吸収率の予測値を用いて連続加熱炉の出側における被加熱材温度を予測する予測部と、予測された被加熱材温度を含む計算結果を出力する出力部と、を備える。

Description

温度予測システム、制御装置、温度予測方法及び制御方法
 本開示は、温度予測システム、制御装置、温度予測方法及び制御方法に関する。本開示は、特に連続鋼帯を含む被加熱材を加熱する連続加熱炉における温度制御、オペレータガイダンス及び炉の運用に用いられる鋼帯温度の予測技術に関し、鋼材製造業又は鋼板加工業などの産業分野で広く利用され得る。
 鋼板の加熱処理は、鋼板の品質に影響する重要な処理であり、温度制御、オペレータガイダンスで用いられる加熱処理後の鋼板温度の推定方法について、種々の検討がされている。
 鋼板温度の推定方法として、公知の伝熱数式モデルを用いて、鋼板の温度推移を計算する手法が広く用いられている。伝熱数式モデルは、加熱炉内の熱放射伝熱現象(放射熱伝達及び対流熱伝達)を炉内ガス温度(炉温)から鋼板への放射熱伝達として扱い、総括熱吸収率(又は総括熱伝達係数)と呼ばれるパラメータを有するモデルである。
 ここで、総括熱吸収率は、炉形状などの設備の特徴によって異なる値となる。総括熱吸収率は、例えば伝熱解析などの数値計算又は伝熱実験に基づいて決められる。
 ただし、総括熱吸収率は、炉内における鋼板の位置及び操業条件(加熱条件)などによっても異なる値となる。そのため、予め設定された(基準となる)総括熱吸収率を、各種の操業条件に対して補正する技術が提案されている。
 特許文献1には、連続焼鈍炉の燃焼ガス流量制御に適用する伝熱数式モデルの総括熱伝達係数を、燃焼ガス流量及び帯材の幅の関数として求める方法が開示されている。特許文献1は、この総括熱伝達係数を用いて燃焼ガス流量を制御することにより、先行材から次行材への帯材の幅の変化に起因する次行材の温度制御への影響を補償できると記載する。
 特許文献2には、加熱炉の総括熱吸収率を加熱炉内の軸流バーナーの火炎長により補正する技術が開示されている。
 特許文献3には、加熱炉の総括熱吸収率を加熱炉内のバーナーの燃焼数(総燃焼量)により補正する技術が開示されている。
 特許文献4には、実操業における変動項目の変化範囲内で予め複数の総括熱吸収率を伝熱解析(数値計算)により求めておき、実操業時には、その変動項目を変数とする回帰式を用いて総括熱吸収率を予測する連続加熱炉の総括熱吸収率の予測方法が開示されている。変動項目として、鋼片の装入温度、鋼片抽出温度、生産量、鋼片在炉時間、各ゾーンの炉温及び総括熱吸収率を算出しようとするゾーンの無次元炉長方向位置、が挙げられており、総括熱吸収率の回帰式はゾーン毎に求められる。
 また、特許文献5には、連続式加熱炉の抽出口におけるスラブ温度の推定誤差に基づき、逐次最小二乗法を行って、炉内複数ゾーンの総括熱吸収率をオンラインで逐次推定し、各ゾーンの総括熱吸収率を更新する技術が開示されている。

 ここで、パラメータとして総括熱吸収率を有する伝熱数式モデルは、炉内の様々な熱放射伝熱現象を単純化したモデルであって、例えば加熱炉の長手方向の熱放射伝熱を考慮しない。実際の熱放射伝熱現象は複雑である。そのため、総括熱吸収率を1つの値に定めた計算によって鋼板温度を高精度に推定することは困難である。
 特許文献1~4の方法は、上記のように、基準となる総括熱吸収率を、操業条件(例えば燃焼数、燃焼ガス流量、在炉時間、各ゾーンの炉温、火炎長など)の操業因子に対して、補正手段(例えば補正係数、回帰式など)を用いて補正することができる。
 しかし、実際の加熱炉は、連続する複数のゾーン(加熱帯)を有する連続加熱炉として構成されており、加熱炉の内部に温度分布が存在する。また、総括熱吸収率への影響因子は、特許文献1~4に開示された因子以外にも、多数存在することが想定される。特許文献1~4の方法では、そもそも加熱炉の長手方向の熱放射伝熱を考慮しない伝熱数式モデルの使用を前提としており、また、全ての影響因子を選択すること又は全ての影響因子による影響を見積もることは困難である。さらに、特許文献1~4の方法では、加熱炉の状態変化(例えば炉内耐火物の経年劣化など)を即座に総括熱吸収率に反映することが難しく、リアルタイム性に欠けるといった課題がある。
 ここで、特許文献5の方法では、逐次最小二乗法を行って、炉内複数ゾーンの総括熱吸収率をオンラインで逐次推定するため、加熱炉の状態変化を即座に総括熱吸収率に反映することができる。しかし、特許文献5の方法では、操業条件の影響(短期的要因)と、加熱炉の状態変化の影響(長期的要因)とを区別できないため、十分な精度向上を期待できない。
 かかる事情に鑑みてなされた本開示の目的は、操業条件及び加熱炉の設備状態の変化を考慮しながら加熱炉内の被加熱材温度の予測が可能な温度予測システム、制御装置、温度予測方法及び制御方法を提供することにある。ここで、本開示の内容は、被加熱材として鋼帯、鋼帯が板状に切断された鋼板、スラブを含む鋼塊の加熱炉内での温度予測にも適用することができる。以下の実施形態は、被加熱材を鋼帯とし、被加熱材温度を鋼帯温度として説明される。被加熱材が鋼板、鋼塊の場合には、以下の説明における鋼帯温度を、それぞれ鋼板温度、鋼塊温度と読み替えることが可能である。
 (1)本開示の一実施形態に係る温度予測システムは、
 連続する複数のゾーンを有する連続加熱炉における被加熱材の温度である被加熱材温度を予測する温度予測システムであって、
 各ゾーンにおける予め定められた前記被加熱材の所定範囲毎の前記被加熱材温度を含む操業データを収集し、各ゾーンの入側から出側の前記被加熱材温度の変化に基づいて、各ゾーンの総括熱吸収率を前記所定範囲毎に算出し、前記総括熱吸収率を前記所定範囲毎の前記操業データに関連付けて保存する収集部と、

 本開示によれば、操業条件及び加熱炉の設備状態の変化を考慮しながら加熱炉内の被加熱材温度の予測が可能な温度予測システム、制御装置、温度予測方法及び制御方法を提供することができる。

 以下、本開示の一実施形態に係る温度予測システム、制御装置、温度予測方法及び制御方法が説明される。本実施形態に係る温度予測システム及び温度予測システムが実行する温度予測方法は、連続する複数のゾーン(すなわち連続する複数の加熱帯、図1の第1~第3ゾーン参照)を有する連続加熱炉における被加熱材の温度である被加熱材温度を予測する。上記のように、本実施形態では、被加熱材が鋼帯(連続鋼帯)であって、被加熱材温度が鋼帯温度であるとして説明する。ただし、上記のように、被加熱材は、鋼帯に限定されず、例えば鋼板又は鋼塊などであり得る。被加熱材が鋼板又は鋼塊である場合に、以下の説明における鋼帯温度は鋼板温度又は鋼塊温度と読み替えて適用される。
 本発明者は、連続加熱炉のゾーン毎に、総括熱吸収率に影響する加熱条件(すなわち連続加熱炉に対する操業条件)について検討を行った。そして、本発明者は、図8に示される連続加熱炉の各ゾーンのヒートバランス(入熱と出熱の関係)と、影響因子と考えられる加熱条件を詳細に調査した。
 入熱として、鋼帯の含熱量、燃料の燃焼熱又は顕熱、燃焼用空気の顕熱、隣接する加熱帯から侵入する炉内ガスの顕熱、が挙げられる。また、出熱として、鋼帯の含熱量、炉内ガスの顕熱、排ガスの顕熱、その他の出熱、が挙げられる。その他の出熱は、例えば炉体散熱、隣接する加熱帯への流出ガスの顕熱、その他の損失熱を含む。
 上記の入熱又は出熱は影響因子に基づいて算出できる。入熱である鋼帯の含熱量はゾーン入側の鋼帯温度から算出できる。燃料の燃焼熱又は顕熱はゾーンの燃料流量(ガス流量)から算出できる。燃焼用空気の顕熱はゾーンのエア流量から算出できる。隣接するゾーンから侵入する炉内ガスの顕熱は、隣接するゾーンの加熱条件(炉温、燃料流量、エア流量など)から算出できる。また、出熱である鋼帯の含熱量はゾーン出側の鋼帯温度から算出できる。炉内ガスの顕熱はゾーンの炉温(雰囲気温度)から算出できる。排ガスの顕熱はゾーンの排ガス温度から算出できる。その他の出熱は炉の設備状態(炉体放散、炉開口部放射損失熱、その他熱損出)から算出できる。
 総括熱吸収率は、ゾーンの入側及び出側の鋼帯の含熱量の違いに基づいて算出される。つまり、総括熱吸収率は鋼帯温度の差から算出される。総括熱吸収率は、ヒートバランスの観点から、加熱条件の変動によって影響されると考えられる。本発明者は、連続する複数のゾーンから構成される連続加熱炉において、総括熱吸収率を精度良く予測するための新たな手法を想起した。本手法では、ゾーン毎の総括熱吸収率を各ゾーン内の鋼帯温度の変化に基づき算出し、ゾーン毎に、総括熱吸収率を出力変数とし、そのゾーンと隣接するゾーンの加熱条件などを入力変数とする機械学習モデルを逐次学習して生成する。本手法は、従来手法で考慮されていなかった要素(隣接する上流側ゾーンの加熱条件、排ガス温度)を、総括熱吸収率の予測モデルの入力変数として取り込むことを特徴の1つとする。また、本手法では、影響重要度の高い因子の選択(変数選択)と総括熱吸収率の推定を同時に行うことができる。また、機械学習モデルの生成をリアルタイムに行うことが可能であり、加熱炉の状態変化を即座に総括熱吸収率に反映することができる。以下、図面を参照しながら、詳細が説明される。
 図1は、本実施形態に係る温度予測システムの構成例を示す模式図である。本実施形態において、温度予測システムは、溶融亜鉛鍍金製造ラインの連続加熱炉における鋼帯温度を予測する。溶融亜鉛鍍金製造ラインは、鉄鋼製品の製造ラインの一例であって、薄板を連続加熱炉で連続的に焼鈍する連続焼鈍プロセスを含む。連続焼鈍プロセスにおいて炉を通過する鋼帯の温度が温度予測システムによって予測される。図1に示すように、溶融亜鉛鍍金製造ラインはポット(亜鉛めっき槽)と、冷却設備と、冷却設備の上流側に配置される連続加熱炉と、を含んで構成される。連続加熱炉は第1ゾーン、第2ゾーン及び第3ゾーンで構成されている。本実施形態において、連続加熱炉は3つのゾーン(加熱帯)を有するが、3つに限定されるものでなく、複数であればよい。また、ゾーンは例えば連続加熱炉を細分化したときの装置単位で区分されてよいし、制御単位で区分されてよい。
 図1に示すように、本実施形態に係る温度予測システムは、データ収集装置と、連続鋼帯温度予測装置と、を備える。
 データ収集装置は、操業中の溶融亜鉛鍍金製造ラインから鋼帯温度、炉温、燃料流量、エア流量、ライン速度(すなわち鋼帯の搬送速度)、排ガス温度などの操業データをリアルタイムに収集する第1収集部を備える。また、データ収集装置は、鋼帯温度の実測値からφcg(実績値)を計算する第2収集部を備える。第1収集部及び第2収集部で収集部が構成される。換言すると、データ収集装置は収集部を備え、収集部が第1収集部及び第2収集部を含む。また、データ収集装置は、収集した情報及び計算した値を保存する実績データベースを備える。ここで、φcgは総括熱伝達係数であって、括弧書きで実測値と予測値を区別する。つまりφcg(実績値)は、実測された鋼帯温度から得られる、実績値の総括熱伝達係数である。また、φcg(予測値)は、後述の予測モデルを用いて計算される、予測された(予測値である)総括熱伝達係数である。
 連続鋼帯温度予測装置は、データ収集装置からφcg(実績値)、炉温、燃料流量、エア流量、ライン速度、排ガス温度などの操業データを取得し、鋼帯温度の計算に用いられる総括熱吸収率の予測モデルを生成する学習部を備える。また、連続鋼帯温度予測装置は、生成された予測モデルを用いてφcg(予測値)をリアルタイムに計算し、φcg(予測値)から連続加熱炉に進入前の鋼帯の温度を予測する予測部を備える。また、連続鋼帯温度予測装置は、予測される進入前の鋼帯の温度などの予測部による計算結果を出力する出力部を備える。出力部は、計算結果を、例えば工場を操業するオペレータが見る計算結果表示モニタに対して出力し、オペレータが計算結果に基づいて炉温などの操業条件を調整することを可能にしてよい。また、出力部は、計算結果を、例えば溶融亜鉛鍍金製造ラインの燃料流量及びライン速度などを制御する制御装置に、直接的に出力して自動制御を可能にしてよい。
 ここで、図1の例において、温度予測システムは、互いに通信可能なデータ収集装置と連続鋼帯温度予測装置の2つの装置で構成されているが、装置構成が限定されるものでない。温度予測システムは、1つ以上の装置で構成されてよく、複数の装置で構成される場合に、各装置が複数の場所に配置されて互いにネットワークでデータの送受信が可能であるように構成されてよい。例えば温度予測システムは1つのコンピュータで構成されて、コンピュータのプロセッサがプログラムによってデータ収集装置及び連続鋼帯温度予測装置として機能してよい。このとき、実績データベースはコンピュータが備えるメモリなどに記憶されてよい。例えば温度予測システムは、1つのコンピュータがデータ収集装置として機能し、別のコンピュータが連続鋼帯温度予測装置として機能する構成であってよい。また、例えば温度予測システムは、データ収集装置及び連続鋼帯温度予測装置の少なくとも一方が、ネットワークで接続された複数のコンピュータで構成されてよい。
 図2は、本実施形態に係る温度予測システムが実行する温度予測方法の処理を示すフローチャートである。温度予測方法の処理は、溶融亜鉛鍍金製造ラインによって鉄鋼製品が製造されている間(すなわち操業中)に実行されて、学習部による予測モデルの生成もリアルタイムに行われる。
 第1収集部は、操業中の溶融亜鉛鍍金製造ラインから操業データをリアルタイムに収集する(ステップS1)。また、データ収集装置は、収集した操業データを連続鋼帯温度予測装置へ送信してよい(ステップS2)。操業データは、ライン内のセンサー類又はプロセスコンピュータ(図1の制御装置)から収集されてよい。ステップS1及びS2は第1収集ステップに対応する。ここで、収集される操業データは、各ゾーンにおける予め定められた連続鋼帯の所定範囲毎の鋼帯温度を含む。ここで、「所定範囲」とは、連続鋼帯の長手方向(すなわち搬送方向)における一定の範囲である。所定範囲は、単位時間における搬送方向への連続鋼帯の移動距離(すなわち通板速度)と操業データのサンプリングの周期に基づいて決定されてよい。また、所定範囲は、連続鋼帯の長さ単位(例えば1m)としてよい。
 第1収集部が収集する各ゾーンにおける操業データは、連続加熱炉の各ゾーンのヒートバランス(図8参照)で、影響因子と考えられる加熱条件を含むことが好ましい。具体的に述べると、収集される操業データは、各ゾーンにおける炉温、排ガス温度、燃料流量、エア流量、入側の鋼帯温度及び出側の鋼帯温度を少なくとも含む。ここで、入側の鋼帯温度及び出側の鋼帯温度は、これらの差である鋼帯温度変化量として与えられてよい。
 また、炉温は、連続鋼帯の搬送方向に離間した複数位置で測定されることが好ましい。複数位置での測定によって、加熱炉の内部の搬送方向における温度分布の影響を取り込み、総括熱吸収率の機械学習モデルの予測精度を向上させることができる。例えば図1の第3ゾーンは、搬送方向に長いため、搬送方向に沿って複数の炉温計が配置されているとする。そして、連続鋼帯の各所定範囲が、各炉温計が配置された位置を通過するタイミングで、炉温が測定されてよい。
 第2収集部は、鋼帯温度の実測値からφcg(実績値)を算出する(ステップS3)。第2収集部は、例えば鋼帯温度変化量及び連続鋼帯の規格(仕様)などに基づいてφcg(実績値)を算出する。ステップS3は第2収集ステップに対応する。また、ステップS1からS3は、第1収集ステップ及び第2収集ステップをまとめた収集ステップに対応する。
 ここで、本実施形態において、連続加熱炉の炉内の長手方向に温度を測定する装置(温度測定装置)が設けられており、温度測定装置によって連続的に連続鋼帯の温度が測定されて、制御装置によって時系列データとして記憶されるとする。時系列データから、連続加熱炉を通過する前後の連続鋼帯の温度変化量を算出することができる。まず連続加熱炉の入側から温度測定装置までの距離及び搬送速度から、連続鋼帯における所定位置が、連続加熱炉の入側から温度測定装置に到達するまでの時間を算出できる。温度測定装置が炉内に複数ある場合にも、同様に温度測定装置間の距離及び搬送速度から、各温度測定地点に到達する時間を算出できる。各温度測定地点での鋼帯温度の時系列データと、各温度測定地点に到達するまでの時間と、を用いて、連続鋼帯における所定位置が連続加熱炉を通過する前後での温度変化量を算出することができ、鋼帯温度の変化量からφcg(実績値)を算出することができる。また、連続する複数のゾーンを有する連続加熱炉について、各ゾーンの入側から出側の鋼帯温度の変化に基づいて、各ゾーンの総括熱吸収率を連続鋼帯の所定範囲毎に算出することができる。
 第2収集部は、各ゾーンの総括熱吸収率(φcg(実績値))を連続鋼帯の所定範囲毎に算出し、算出した総括熱吸収率を所定範囲毎の操業データに関連付けて、実績データベースに保存する。また、実績データベースには、第1収集部によって収集された操業データも保存される。
 ここで、第2収集部は、例えば鋼帯温度変化量及び連続鋼帯の規格などに基づいてφcg(実績値)を算出するが、具体的な計算式として例えば以下の式(1)を用いることができる。
 板厚が比較的薄く、板厚方向の温度勾配を無視し得る連続鋼帯の場合に、連続鋼帯の温度変化を、総括熱吸収率(φcg)を使用した式(1)の伝熱数式モデルで算出することができる。ここで、ρは鋼帯の比重[kg/m]である。Cは鋼帯の比熱[kcal/(kg・K)]である。hは板厚[m]である。Tは対象ゾーンにおける連続鋼帯の所定範囲内の平均温度[℃]である。Tは炉温[℃]である。φcgは総括熱吸収係数である。σはステファンボルツマン係数である。ここで、対象ゾーンは、複数のゾーンのうちの計算の対象となっているゾーンを指す。φcg(実績値)の算出は複数のゾーンの全てを対象に実行される。そのため、対象ゾーンは、複数のゾーンのうちの特定のゾーンではなく、任意の1つのゾーンであると言える。
 また、熱流束(q[kcal/(m・s)]は、式(2)のように連続鋼帯の長手方向の温度勾配から算出できる。ここで、dT/dtは、各ゾーンにおける連続鋼帯の所定範囲の温度変化を、各ゾーンの搬送時間で除した値として求めることができる。各ゾーンにおける連続鋼帯の所定範囲の温度変化は「ゾーン出側の鋼帯温度-ゾーン入側の鋼帯温度」で算出される。
 式(1)及び式(2)より、連続鋼帯の所定範囲における総括熱吸収率(φcg[無次元量])は式(3)で算出される。
 学習部は、上記のように、鋼帯温度の計算に用いられる総括熱吸収率の予測モデルを生成する。図2の例において、φcg(予測値)を計算するための予測モデルは、予め定められた更新周期又は操業条件変更タイミングで生成(又は更新)される。更新周期又は操業条件変更タイミングに該当する場合に(ステップS4のYes)、学習部は、総括熱吸収率の予測モデルを生成する(ステップS5)。ステップS4及びS5は学習ステップに対応する。ステップS4の更新周期は、一例として、連続鋼帯のコイル全長に渡る所定範囲毎の操業データの実績が採取された直後に、1コイル毎の操業データの実績が実績データベースに格納されるまでの時間を周期とするものであってよい。更新周期は、別の例として、コイル内の特定部分(例えば先端部、中央部又は尾端部)毎の操業データの実績が格納されるまでの時間が用いられてよい。更新周期は、さらに別の例として、予測モデルを生成する装置の処理能力に基づいて定められる一定周期であってよいし、オペレータによって操業条件が変更されるタイミングに基づいて定められてよい。
 本実施形態において、総括熱吸収率の予測モデルとして、機械学習の手法によって生成される機械学習モデル(学習済みモデル)が用いられる。学習部は、複数のゾーンのうちの任意の1つのゾーンを対象ゾーンとして、対象ゾーンの総括熱吸収率を出力変数とし、対象ゾーンと対象ゾーンの上流側のゾーンの操業データを入力変数とする対象ゾーンの機械学習モデルを、所定範囲毎に逐次学習する。そして、学習部は、各ゾーンの機械学習モデルを生成する。上記のように、実績データベースには操業データがリアルタイムに収集されて蓄積されている。学習部は、実績データベースから、各ゾーンにおける炉温、排ガス温度、燃料流量及びエア流量、を少なくとも取得して、これらを機械学習モデルの入力変数として用いる。すなわち、機械学習モデルの入力変数は、各ゾーンにおける炉温、排ガス温度、燃料流量及びエア流量を少なくとも含む。そして、学習部は、これらの操業データの実績値(実績データ)を学習用データの入力変数として用いる。また、学習用データの入力変数(少なくとも炉温、排ガス温度、燃料流量及びエア流量の実績値)に対応する総括熱吸収率の実績値が、学習用データの出力変数として用いられる。学習部は、更新周期などのタイミングで、新たに蓄積された実績データを用いる機械学習(逐次学習)を行って、機械学習モデルを更新できる。
 機械学習の手法は限定されない。機械学習モデルは、例えばLasso回帰、リッジ回帰、線形回帰、局所回帰、主成分回帰、PLS回帰、ニューラルネットワークを含む機械学習の手法を用いて生成される。
 図3は、総括熱吸収率(φcg(予測値))を出力する機械学習モデルを説明するための図である。第1ゾーンの機械学習モデルは、第1ゾーンの加熱条件である炉温、排ガス温度、燃料流量及びエア流量(炉温1、排ガス温度1、燃料流量1及びエア流量1)を入力変数に含み、第1ゾーンの総括熱吸収率(φcg1)を出力変数とする。
 第2ゾーンの機械学習モデルは、第2ゾーンの加熱条件(炉温2、排ガス温度2、燃料流量2及びエア流量2)と上流側の第1ゾーンの加熱条件を入力変数に含み、第2ゾーンの総括熱吸収率(φcg2)を出力変数とする。
 第3ゾーンの機械学習モデルは、第3ゾーンの加熱条件(炉温3-1~3-5、排ガス温度3、燃料流量3、エア流量3)と上流側の第1ゾーン及び第2ゾーンの加熱条件を入力変数に含み、第3ゾーンの総括熱吸収率(φcg3)を出力変数とする。炉温3-1~3-5は、第3ゾーン内の鋼帯の搬送方向に間を空けて配置された5つの炉温計によって測定されるそれぞれの炉温に対応する。
 また、図3に示すように、各ゾーンの機械学習モデルの入力変数は、各ゾーンに進入する鋼帯の含熱量の影響因子(上流側のゾーンの鋼帯温度及び温度変化量)をさらに含んでよい。また、各ゾーンの機械学習モデルの入力変数は、鋼帯のサイズ情報(板厚及び板幅)と、加熱条件以外の操業条件(鋼帯の搬送速度)と、をさらに含んでよい。ここで、第1ゾーン~第3ゾーンの燃焼ガスが1つの煙道に集約されることがある。このとき、排ガス温度1~3は、1つの煙道に集約された後の温度(すなわち同じ温度)を用いてよい。
 予測部は、各ゾーンの機械学習モデルを用いて鋼帯温度を予測する(ステップS6)。予測部は、連続加熱炉に進入前の連続鋼帯に対して、連続加熱炉の出側における鋼帯温度を予測する。予測部は、さらに連続加熱炉の通過途中における連続鋼帯の温度を予測してよい。ステップS6は予測ステップに対応する。
 詳細に述べると、予測部は、対象ゾーンの機械学習モデルに、対象ゾーンと対象ゾーンの上流側のゾーンの操業データを入力して、対象ゾーンの総括熱吸収率の予測値(φcg(予測値))を計算する。ここで、対象ゾーンは、複数のゾーンのうちの計算の対象となっているゾーンを指す。φcg(予測値)の算出は複数のゾーンの全てを対象に実行される。そのため、対象ゾーンは、複数のゾーンのうちの特定のゾーンではなく、任意の1つのゾーンであると言える。予測部は、各ゾーンで総括熱吸収率の予測値を計算し、各ゾーンの総括熱吸収率の予測値を用いて連続加熱炉の出側における鋼帯温度を予測する。
 実際の連続加熱炉は、複数のゾーンに分かれており、各ゾーンにおける加熱方法が異なる(直火又はラジアントチューブなど)ことが多い。本開示の手法は、実際の連続加熱炉の構成に合致しており、各ゾーンの機械学習モデルが上記のように生成されて、隣接する上流側ゾーンの加熱条件、排ガス温度を考慮することができる。そのため、実態に合った正確な計算が可能になる。また、機械学習モデルは逐次学習によって更新されて、操業中において連続加熱炉の総括熱伝達係数の正確な値(連続加熱炉の状態変化を反映した値)を求めることができ、正確な鋼帯温度の予測を持続させることができる。
 出力部は、予測部によって予測された鋼帯温度を含む計算結果を出力する(ステップS7)。ステップS7は出力ステップに対応する。
 出力部は、計算結果として、連続加熱炉に進入前の連続鋼帯について予測された、連続加熱炉の出側における鋼帯温度及び各ゾーン出側の鋼帯温度を出力してよい。計算結果は、連続鋼帯温度予測装置と接続された計算結果表示モニタ(表示装置の一例)に表示されてよい。また、表示装置はネットワークを経由して予測部と接続される構成であってよい。ここで、予測された鋼帯温度が、予め定められた目標温度に対して所定の許容範囲を外れる(差が大きい)場合に、計算結果が表示されるだけでなく、警報が出力されてよい。
 また、制御装置が、温度予測システムから出力された、予測された鋼帯温度に基づいて連続加熱炉を制御してよい。制御装置は、予測された鋼帯温度が目標とする温度となるように、燃料流量を設定する。
 以下、本開示の効果を実施例に基づいて具体的に説明するが、本開示はこれら実施例に限定されるものではない。
 上記の実施形態の手法によって、総括熱吸収率(φcg(予測値))を予測するための機械学習モデルが生成された。本実施例において、φcg(実績値)を目的変数(出力変数)とし、上記の加熱条件を含む操業データを説明変数(入力変数)として、Lasso回帰による線形モデルが生成された。この機械学習モデルの生成において、pythonの機械学習ライブラリであるscikit-learnが利用された。
 図4は、第3ゾーンの機械学習モデルの上位の特徴量重要度を示す図である。加熱条件のうち、第3ゾーンの炉温、第2ゾーンの炉温及び排ガス温度の特徴量重要度は高い。ここで、排ガス温度は第1~第3ゾーンで共通である。加熱条件以外では、第2ゾーンの鋼帯温度変化量の特徴量重要度が高い。これに対して、加熱条件のうち、燃料流量及びエア流量の特徴量重要度は相対的に低い。また、鋼帯の板幅及び搬送速度の特徴量重要度は相対的に低い。
 機械学習において、特徴量重要度に基づいて、適切な入力変数を選択することが好ましい。例えばゼロに近い閾値を設定し、特徴量重要度が閾値以下のものをモデルに組み込まないという処理が実行されてよい。また、機械学習にLasso回帰を適用して、特徴量重要度の小さい入力変数の係数をゼロに近づけ、特徴量重要度に基づく適切な入力変数が選択されてよい。本実施例において、第2ゾーンの鋼帯温度変化量の特徴量重要度が高いことが示されている。本開示の手法では各ゾーンでの機械学習を行っているため、鋼帯温度変化量の特徴量重要度が高いことは妥当である。
 また、本実施例において、従来手法で考慮されていなかった排ガス温度の特徴量重要度が高いことが示されている。連続加熱炉で生成された熱エネルギーのうち、鋼帯に吸収されなかった分が排ガス温度で表現されていると考えられるため、排ガス温度の特徴量重要度が高いことは妥当である。
 図5は、排ガス温度と総括熱吸収率の変化を例示する図である。横軸は時間である。排ガス温度が急激に低下するタイミング(11000秒付近)から、約2400秒後に総括熱伝達係数も低下しており、排ガス温度と総括熱吸収率とに相関がある。このことは、排ガス温度の特徴量重要度が高いことに対応している。
 燃料流量(ガス流量)については、工場のラインにおいて炉温及び鋼帯温度などの様々なパラメータがフィードバックされて制御されているため、対象ゾーンの伝熱に対して、他のゾーンの燃料流量の変化が影響していると考えられる。したがって、従来手法で考慮されていなかった燃料流量も考慮することは、予測精度を高めることに寄与すると考えられる。
 図6は第3ゾーンの総括熱吸収率の予測精度を示す図である。横軸はφcg(実績値)であって、計算値と示されている。縦軸はφcg(予測値)であって、予測値と示されている。φcg(実績値)は式(3)によって算出される。予測値は機械学習モデルによって出力される。四角で示されるプロットは、学習データ以外のデータを用いた予測精度である。学習データ以外のデータとは、機械学習モデルの汎用性能を評価するための検証用のデータである。丸で示されるプロットは、学習データを用いた予測精度である。学習データは、機械学習モデルの学習に用いたデータの一部である。第3ゾーンの総括熱吸収率(φcg3)の予測において、本実施例が良好な予測精度を示すことが確認された。
 また、φcg(予測値)を用いて、連続加熱炉の出側における鋼帯温度を予測する数値シミュレーションが行われた。本シミュレーションでは、2秒の周期で操業データが収集されて、その周期で総括熱伝達係数を変化させ、一次遅れとしてシミュレーションを行った。第1~3ゾーンのそれぞれで総括熱吸収率を設定し、式(1)の微分方程式に基づいて、連続加熱炉出側の鋼帯温度(第3ゾーン出側の鋼帯温度)が算出された。
 図7Aは、比較例であって、φcgを一定とする従来手法を採用した場合の鋼帯温度の予測結果を示す。図7Bは、実施例であって、上記の本実施形態の手法でφcg(予測値)を算出して、φcg(予測値)に基づく鋼帯温度の予測した結果を示す。
 図7A及び図7Bの「data」は実際のラインにおける鋼帯温度(鋼帯温度実績)である。図7A及び図7Bの「sim」はシミュレーションによる鋼帯温度の予測結果である。比較例は、鋼帯温度実績に対する予測誤差が最大で約13℃であって、大きな誤差が生じている。実施例は、鋼帯温度実績に対する予測誤差が-5℃~+5℃の範囲内であって、良好な予測精度を示している。
 比較例との対比から明らかなように、本開示手法は操業条件変動に合わせて高精度に鋼帯温度の予測が可能である。ここで、計算の周期は、短いことが好ましいが、本実施例のシミュレーションのような短周期(2秒)に限定されない。例えば連続加熱炉を通過する鋼帯が切り替わるとき、オペレータが手動で設定変更を行ったときなどラインの操業条件の変動が発生するタイミングで総括熱伝達係数が再計算されることが好ましい。
 本開示の実施形態について、諸図面及び実施例に基づき説明してきたが、当業者であれば本開示に基づき種々の変形又は修正を行うことが容易であることに注意されたい。したがって、これらの変形又は修正は本開示の範囲に含まれることに留意されたい。例えば、各構成部又は各工程などに含まれる機能などは論理的に矛盾しないように再配置可能であり、複数の構成部又は工程などを1つに組み合わせたり、或いは分割したりすることが可能である。本開示に係る実施形態は装置が備えるプロセッサにより実行されるプログラム又はプログラムを記録した記憶媒体としても実現し得るものである。本開示の範囲にはこれらも包含されるものと理解されたい。

     各ゾーンにおける予め定められた前記被加熱材の所定範囲毎の前記被加熱材温度を含む操業データを収集し、各ゾーンの入側から出側の前記被加熱材温度の変化に基づいて、各ゾーンの総括熱吸収率を前記所定範囲毎に算出し、前記総括熱吸収率を前記所定範囲毎の前記操業データに関連付けて保存する収集部と、
     前記複数のゾーンのうちの任意の1つのゾーンを対象ゾーンとして、前記対象ゾーンの前記総括熱吸収率を出力変数とし、前記対象ゾーンと前記対象ゾーンの上流側のゾーンの前記操業データを入力変数とする前記対象ゾーンの機械学習モデルを、前記所定範囲毎に逐次学習し、各ゾーンの前記機械学習モデルを生成する学習部と、
     前記対象ゾーンの前記機械学習モデルに、前記対象ゾーンと前記対象ゾーンの上流側のゾーンの前記操業データを入力して、前記対象ゾーンの前記総括熱吸収率の予測値を計算し、各ゾーンの前記総括熱吸収率の予測値を用いて前記連続加熱炉の出側における前記被加熱材温度を予測する予測部と、
     予測された前記被加熱材温度を含む計算結果を出力する出力部と、を備える、温度予測システム。
  2.  収集される前記操業データは、各ゾーンにおける炉温、排ガス温度、燃料流量、エア流量、入側の被加熱材温度及び出側の被加熱材温度を少なくとも含み、
     前記機械学習モデルの入力変数は、各ゾーンにおける炉温、排ガス温度、燃料流量及びエア流量を少なくとも含む、請求項1に記載の温度予測システム。
  3.  前記炉温は、前記被加熱材の搬送方向に離間した複数位置で測定される、請求項2に記載の温度予測システム。
  4.  前記機械学習モデルは、Lasso回帰、リッジ回帰、線形回帰、局所回帰、主成分回帰、PLS回帰、ニューラルネットワークを含む機械学習の手法を用いて生成される、請求項1から3のいずれか一項に記載の温度予測システム。
  5.  請求項1から4のいずれか一項に記載の温度予測システムによって出力された、予測された前記被加熱材温度に基づいて前記連続加熱炉を制御する、制御装置。
  6.  連続する複数のゾーンを有する連続加熱炉における被加熱材の温度である被加熱材温度を予測する温度予測システムが実行する温度予測方法であって、
     各ゾーンにおける予め定められた前記被加熱材の所定範囲毎の前記被加熱材温度を含む操業データを収集し、各ゾーンの入側から出側の前記被加熱材温度の変化に基づいて、各ゾーンの総括熱吸収率を前記所定範囲毎に算出し、前記総括熱吸収率を前記所定範囲毎の前記操業データに関連付けて保存する収集ステップと、
     前記複数のゾーンのうちの任意の1つのゾーンを対象ゾーンとして、前記対象ゾーンの前記総括熱吸収率を出力変数とし、前記対象ゾーンと前記対象ゾーンの上流側のゾーンの前記操業データを入力変数とする前記対象ゾーンの機械学習モデルを、前記所定範囲毎に逐次学習し、各ゾーンの前記機械学習モデルを生成する学習ステップと、
     前記対象ゾーンの前記機械学習モデルに、前記対象ゾーンと前記対象ゾーンの上流側のゾーンの前記操業データを入力して、前記対象ゾーンの前記総括熱吸収率の予測値を計算し、各ゾーンの前記総括熱吸収率の予測値を用いて前記連続加熱炉の出側における前記被加熱材温度を予測する予測ステップと、
     予測された前記被加熱材温度を含む計算結果を出力する出力ステップと、を含む、温度予測方法。
  7.  収集される前記操業データは、各ゾーンにおける炉温、排ガス温度、燃料流量、エア流量、入側の被加熱材温度及び出側の被加熱材温度を少なくとも含み、
     前記機械学習モデルの入力変数は、各ゾーンにおける炉温、排ガス温度、燃料流量及びエア流量を少なくとも含む、請求項6に記載の温度予測方法。
  8.  請求項6又は7に記載の温度予測方法によって出力された、予測された前記被加熱材温度に基づいて前記連続加熱炉を制御する、制御方法。
