・設計された実験データではなく正常な運転データを使用する。
・少数の運転点で長期化する定常状態運転を明らかにする。
・プロセス時間動特性を明らかにする。
・モデル入力間の相互相関を明らかにする。
・解析/運転パラメータへの計測されない影響を明らかにする。
・マージして、主要な全てのプロセスパラメータの正常/異常ステータスに関する単一の要約トレンドを提供する。
・同じプロセスサブエリア内の他のモデルとマージして、そのプロセスサブエリアの正常/異常ステータスに関する要約トレンドを提供する。
・主要な運転パラメータの現在値を推定する
・主要な運転パラメータの無効な計測値を早期に検出する
・主要な運転パラメータの将来的な異常エクスカーションを予測する
異常事象や、製品品質等の主要なパラメータ計測値に関しては、以下の内容を把握することが重要である。
・オンラインアナライザまたはラボラトリによって正しい値が提供されているか?
・閉ループプロセス制御で使用されているモデルは品質の値を正しく予測しているか?
・プロセスの変化または異常事象に起因する重大な品質エクスカーションが存在する可能性があるか?
・アナライザまたはラボラトリの値の予測値はどうなっているか?
図2に示すモデル計算プロセスは、以下の4つの主要部分に分割することができる。
A.リアルタイムのデータ収集および前処理
B.モデルおよび統計的有意性の計算
C.プロセスオペレータに対する複数のモデル結果の要約
D.事象解析に関する診断表示の提供
データは様々な周期でシステムに取り込まれる。標準的なプロセス計測値(温度、圧力、流量等)は、通常、非常に頻繁に利用可能となり、少なくとも1分あたり一度の頻度でシステムに取り込まれる。特定の解析に左右されるが、オンラインアナライザからの値は、通常、10〜30分毎に利用可能となる。ラボラトリの結果は、通常、1日に一度〜1週間に一度の頻度で利用可能である。ラボラトリの結果を除く他の計測値は全て規則的なサンプルスケジュールでシステムに取り込まれる。ラボラトリの結果については、現場サンプルの収集およびラボラトリ解析の実行において手作業が必要となるため、サンプルサイクルに大きなばらつきが発生し得る。
オンラインアナライザおよびラボラトリ計測に対する推論モデルは、通常、部分最小二乗(PLS)回帰、ニューラルネット、または段階的線形回帰を使用してフィッティングされる。図2では次の3種類の異常事象が識別される。第1は品質計測値自体における差し迫った問題(Yestimate値を使用して識別)、第2は異常事象によって引き起こされる重大な品質エクスカーションの予測(Ypredicted値を使用して識別)、第3はモデルまたは生の計測のいずれかにおける長期的なドリフト問題(生のバイアス(Raw Bias)を使用して識別)である。モデルの別の用途として、プロセス制御アプリケーションで使用する推定値(Ycontrol)を算出することができる。
この3種類の推論品質尺度を計算するためのモデルは、以下の3つの主成分から構成されている。
・モデル入力と品質計測との時間同期
・推論モデル計算
・バイアス計算と更新
品質計測値は、通常、プロセスの変化に対して応答するのが最も遅い。従って、モデルへの入力は、品質計測と時間同期される必要がある。この時間同期は、図2の中で用語「G」で示している。これは、微分差分方程式またはラプラス変換伝達関数によって非常に簡単に表現される動的モデルであり、以下に示すような一次むだ時間モデル等がある。

・Yestimate計算では、種々の入力と品質計測を時間同期するために動的モデル「G」が使用される。
・Ycontrol計算では、動的モデル「G」の代わりに、むだ時間項e−TD*sを持たない動的モデル「G*」が使用される。尚、他のモデルパラメータは全て「G」の場合と同じである。
・Ypredicted計算では、入力は時間同期されない。時間同期が存在しないので、全ての入力が現在値のまま維持される場合、Ypredicted値は「Y」の最終的な定常状態値の推定値となる。
3種類の推論推定の全てについて、推論モデルは同じである。モデルの計算には、カルマンフィルタ、部分最小二乗(PLS)回帰、ニューラルネット、または段階的回帰等の多種多様なモデルを使用できる。しかし、好ましいのはPLSモデルである。入力が、通常、相互相関しており、計算が非常に簡単であり、モデル結果への各入力の寄与(contribution)が容易に特定できるためである。変換によって容易に補償できないほど強力な非直線性をプロセスが有する場合は、ニュートラルネットモデルがふさわしいかもしれない。

品質を推定するモデルは、モデルの誤差を補償するため、および実際の計測値に影響を及ぼす計測されないまたはモデル化されない結果を補償するために、継続的に更新される必要がある。モデルの付加的なバイアス項を更新するのが最も簡単な手法である。バイアスの初期値は、モデル開発段階で決定されるモデル定数である。これは、モデル推定値と実際の値(ここでは「生のバイアス(Raw Bias)」と称する)との残差に基づいて更新される。

異常事象検出の場合、異常事象の可能性があることをいつ結果は示しているかをコンソールオペレータが把握できるように、数値モデルの結果にはコンソールオペレータ用の解釈が必要である。この解釈を作成するためのメカニズムでは、簡単な「ファジファイア(fuzzifier)」およびモデル残差の統計的変動(標準偏差で表現されるような)を使用して、異常事象の可能性の推定値を作成する必要がある。
品質計測での問題を検出するには、実際の品質計測値Yと推定された品質計測値Yestimateとの間の統計的に大きな差を探索する。この差は、品質推定残差である。この残差の統計的な正常域は、軽度のプロセス不調時に残差の標準偏差から算出する必要がある。図3の例に示すように、「正常域」である可能性が高い領域を実際に定義すると、データの99.9%が存在する範囲ということになる。この一組の限界点は、ゼロ(この残差の平均)からおよそ3.5標準偏差離れた点に対応する。これらの限界点を変更して、感度を上げたり下げたり調整することができる。
将来的に重大な品質エクスカーションが発生する可能性は、Ypredicted.の値と品質限度とを比較することにより推定される。モデルの品質によっては、Ypredicted.の値とYの実際の将来値との間には若干の誤差が発生する。この誤差の推定には、品質推定残差(Yestimate−Y)の確率分布が最適である。ガウス分布を想定した場合、図5はYの将来値とYpredictedとの間のばらつきを示す。この例では、Ypredictedは1.3標準偏差であり、品質上限を超えている。このYpredicted値については、Yの将来値の90%は品質上限を上回り、10%が品質上限を下回る。特定の可能性推定値について、この表2では、特定の可能性値について必要とされる上限を超えるオフセットを示している。
モデルの問題または長期のキャリブレーションドリフトは、生のバイアス(Raw Bias)の値に現れる。この2つの問題は、互いに区別するのが困難ないし不可能な場合がある。良好な推定機能を使用してモデルが稼動状態にされていると仮定すると、モデルの問題は、品質値に実際に影響するのにモデル内に含まれない何らかの要因における変化、相関構造の変化、またはプロセス運転条件の変化に起因する入力と出力との間の時間動特性の関係の変化に起因する。キャリブレーションのドリフトは、ゼロと計測値の範囲の両方またはいずれかに影響を及ぼす場合がある。
オペレータ用ディスプレイの目的は、潜在的な異常事象が検出されたことをオペレータに通知し、オペレータがその状況を診断するのに必要な支援情報を迅速に提供することにある。この情報は、図7に示すように、一連のトレンドおよび分布棒グラフによって提供される。

正確なモデルの開発で鍵となるのは、高品質のトレーニングデータセットを備えることである。高品質のトレーニングデータセットを決定する指標は次のとおりである。
・トレーニングデータのS/N比が良好である
・計測可能な、解析への全ての影響を含む。
・生データの適切な数学的変換(特に時間同期化で必要)を含む。
・異常なプロセス運転に関する注釈を含む。
・プロセス/制御システム構成の補助的指標を含む。
・対象とする運転範囲に及ぶ。
・種々の運転点のバランスの取れた表現を含む。
・実際のプロセス状況を表現していない不良データ(アウトライアー)を除外する。
このステップでは、履歴プロセス運転が、計画された推論モデル開発と関連していた時期、およびモデルが適用される運転モードを識別することが必要である。これらのモデルは経験的なものであるため、データ内の相関構造に依存する。その相関構造は、運転モードに応じて変化する可能性がある。この段階では、運転内に存在する運転モードと、この運転モードでプロセスが運転されていた時期を識別する必要がある。その後、モデル構築段階では、これらの運転モードのうち、どの運転モードを結合すれば、運転をカバーするのに必要な合計のモデル数を削減できるかを決定する必要がある。更に、品質の尺度に影響を与えると考えられる装置構成モードが存在する場合もある。
このステップでは、時間同期化の計算を目的としてオフライン品質計測値の「代わりに使用できる」オンライン計測値を選択することが必要である。ラボラトリサンプルはまれにしか取得されないので、ラボラトリ計測値と同時に変化するとみられる類似のオンライン計測値に依存する必要がある。例えば、95%沸点は、最終沸点FBPと強く関連付けられているとする。FBP推論モデルでは95%沸点と強く関連付けられた計測値を使用するとみられ、この強く関連付けられた計測値と95%沸点との時間同期は、FBPとの時間同期と同じになると想定される。
この方法では、正常運転のデータを使用して推論モデルを作成することが可能なため、プロセス用に計画された実験的試験にかかるコストを回避できる。計画された実験によってプロセスが誘起されない場合、このモデルを構築するのに必要な情報はプロセスの不調および運転点の変化からもたらされる。
データ内に不正な値が多数含まれることがよくある。一般に識別される内容は、飽和/オフスケール計測、計測器のキャリブレーション、および履歴システムデータ収集障害である。通常、中度から重度のプロセス外乱は、プロセス運転のシャットダウンまたは重大な変化を引き起こさない限り、異常データとして分類されない。
データサンプルは、その値が計測される実際のプロセス条件を表していない場合に限り(例えば、送信機の範囲外でプロセスが運転されていた)、アウトライアーとして判断されるべきである。品質計測値が不良である期間はいずれも、破棄する必要がある。但し、最終的には少数の候補モデル入力しかモデルに取り込まれないので、モデルトレーニングデータに取り込み可能なサンプル時間は評価対象の特定の入力セットに応じて変化する。
定常運転期間からの限られた量のデータだけがトレーニングデータセットに含められる。共通の定常運転点が複数存在する場合は、それぞれの定常運転点から同様のデータ量を選択する必要がある。定常運転からのデータ量の合計は、通常、合計データセットの25%程度とするべきである。
データフィルタを構築することにより、アルゴリズムで定常運転を識別し、削除することができる。このフィルタに基づいて、品質値の変化率(ROC)または他の重要な運転性能指標を判定するのが最も一般的である。このようなデータフィルタは、以下の計算を行うことにより構築できる。

このように、定常運転の大部分は削除されている。
これらの範囲を識別する目的は、計測値が飽和している可能性がある(例えば、送信機の範囲外で)データ、または非常に非線形な運転の領域でプロセスが運転されている(例えば、高いタワーデルタ圧力によって示されるタワーフラッディング)データをアルゴリズムによって除外することにある。この情報はまた、オンラインシステムの全体エラー検出計算でも使用される。
前述のフィルタに加えて、追加のデータフィルタを作成することにより、極めて異常な運転の時間中のデータを自動的に除外することができる。
S/N比が不十分となる原因は、データ内に強力な信号が不足している(計測値をその設定点の近くに維持する良好なプロセス制御が原因となる場合が多い)ことにあると考えられる。または、信号内の非常に大きなノイズが原因となる場合もある。強力な信号の不足が原因である場合、これらの尺度はモデルから効果的に外される。
最も一般的に必要とされるフィルタは、スパイクフィルタ、ミッドパスフィルタ、およびローパスフィルタである。スパイクフィルタは、計測値の変化を、予め設定された最大変化までと制限する場合がある。データに適用されるフィルタはいずれもオンラインシステム内で再生される必要があるため、これらは物理的に実現可能とする必要がある。フィルタは、位相遅れを最小限に抑えるように選択する。
モデルのフィッティングを向上させるために、複数の周知の変換が採用される。例えば、組成アナライザおよびタワーオーバーヘッド圧力のログ変換、無次元比への流量の変換、トレイ温度への圧力補償の適用等がある。
データ内の動特性を処理するために、各候補入力とアナライザ値との間の動的モデルが開発される。これらは、信号入力・信号出力モデル(SISO)であり、通常は、単なる一次モデルにむだ時間モデルを加えたものである。

計測されない恒久的な負荷外乱がデータ内に存在しない場合、微分データのモデリングからの係数は、十分に評価されたデータのモデリングからの定数と類似すべきである。計測されない恒久的な負荷外乱は、モデルに極度にバイアスをかける可能性がある。このバイアスに関する問題を回避するために、モデルは十分に評価されたデータではなく微分データの形式を使用して開発される。

前のステップで作成したトレーニングデータセットを使用すれば、ツールおよび方法を構築する標準的なモデルによって推論モデルを構築できる。この目的は、良好な推論モデルをもたらす最小数の入力を使用することにある。式17を参照すると、ほぼ同等の推定強度を有する相関した代替入力の中から選択する場合は、TauおよびTDに対して最も大きな値を有する入力を選択することにより、推論モデルは異常エクスカーションをより早く予測し、プロセスを場合によってはより適切に制御することができるようになる。
図11は一組の蒸留塔を示す。ここで、第1の塔T−101はエタン、メタン、水素等の軽質炭化水素を除去するように設計され(脱エタン塔(de−ethanizer)として知られている)、第2の塔T−201はC3炭化水素(主にプロパン)を抽出するように設計されている。

- オンラインアナライザまたはラボラトリ解析によって計測される運転パラメータの異常事象を検出するための推論推定を計算するオンラインシステムであって、
a)リアルタイムデータコレクタ、
b)リアルタイムデータプリプロセッサ、
c)モデルおよび統計的有意性計算器、
d)モデルから得られる複数の結果を要約する手段、および
e)事象解析用の診断ディスプレイ
を含み、
前記モデルは、(イ)モデル入力と運転パラメータとの時間同期、(ロ)推論モデル計算、および(ハ)バイアス計算と更新から構成される3つの成分を含み、
前記(イ)の時間同期は、下記式1の「G」で決定され、

- 前記モデルおよび統計的有意性計算器が、さらに、前記モデルの問題および前記オンラインアナライザにおける長期キャリブレーションドリフト問題を判定することを特徴とする請求項1に記載のシステム。
- 前記モデルおよび統計的有意性計算器が、前記運転パラメータの値の推定値を求めることを特徴とする請求項1に記載のシステム。
- 前記モデルおよび統計的有意性計算器が、プロセス制御アプリケーション用に将来の運転パラメータ(Ycontrol)を更に決定することを特徴とする請求項7に記載のシステム。
- 前記Yestimateのためのモデルへの入力値が、対応するラボラトリ解析またはオンライン解析と時間同期されることを特徴とする請求項7に記載のシステム。
- 前記推論モデルが、カルマンフィルタ、部分最小二乗(PLS)回帰、ニューラルネットおよび段階的回帰を使用して構築可能であることを特徴とする請求項1に記載のシステム。
- 前記推論モデルが、部分最小二乗(PLS)モデルであることを特徴とする請求項10に記載のシステム。
- 前記モデルがバイアス項を含むことを特徴とする請求項10に記載のシステム。
- 運転パラメータのオンライン解析またはラボラトリ解析が提供されるたびに、前記バイアス項が更新されることを特徴とする請求項13に記載のシステム。
- 前記統計的有意性計算器が、前記計測された運転パラメータと前記運転パラメータの推定値の間に統計的に有意な差が存在するかどうかを判定することを特徴とする請求項8に記載のシステム。
- 前記統計的有意性計算器が、前記計測された運転パラメータと前記運転パラメータのモデル推定値の差に基づいて更新されるバイアス項を含むことを特徴とする請求項15に記載のシステム。
- 前記モデルが、さらに、前記運転パラメータの予測値と前記運転パラメータの運転限界を比較することにより、将来の運転限界エクスカーションを決定することを特徴とする請求項1に記載のシステム。
