収集部(111)は、前記設備の複数の信号の収集データを時系列に収集する。分割部(112)は、時系列の前記収集データを複数のグループに分けることによってグループ別の収集分割データを生成する。学習部(113)は、グループ別に前記収集分割データを学習データにして機械学習を行うことによって、学習済みモデルである正常モデルをグループ別に生成する。状態検知部は、グループ別の前記正常モデルを用いて前記設備の状態を検知する。

Description

状態検知システム、状態検知方法および状態検知プログラム
 本開示は、設備の異常を検知するための技術に関するものである。
 生産設備の異常を検知することが望まれている。
 特許文献1は、生産設備の異常検知を目的とした技術を開示している。
 その技術では、まず、設備の稼働状況が定常状態である時に、複数のビット信号からなる稼働データが収集される。次に、設備の稼働状況を判定するための正常モデルが生成される。次に、正常モデルを利用して設備の稼働データの期待値と稼働データの実測値が比較される。そして、設備の稼働状況が非定常状態であるか否かが検出される。
特許第6678824号公報
 特許文献1の技術には、生産設備の規模が大きくなり、信号数が増えた場合に、信号間の関係性が複雑になり、必要な学習時間および必要な学習データ量が増える、という課題がある。
 工場の生産設備では、複数のワークが並列に処理されることが多い。複数のワークが並列に処理され各処理の同期が取られていない場合、ワークの投入タイミングのズレ等の影響によって、各ワークの処理タイミングが毎回異なる可能性がある。
 そのため、1個の学習済みモデルで設備全体の動作を学習する場合、複数のワークの処理タイミングを網羅しようとすると、必要な学習時間および必要な学習データ量が増大する。
 本開示は、設備の状態を検知するための学習済みモデルを少ない学習時間および少ない学習データ量で生成できるようにすることを目的とする。
 本開示の状態検知システムは、ワークが流される設備の状態を検知するシステムである。
 前記状態検知システムは、
 前記ワークの流れに応じて順番に反応する複数の信号の複数の信号値を示す収集データを時系列に収集する収集部と、
 時系列の前記収集データに含まれる前記信号値の集合を複数のグループに分けることによって、グループ内の1つ以上の信号値を時系列に示す収集分割データをグループ別に生成する分割部と、
 グループ別に前記収集分割データを学習データにして機械学習を行うことによって、学習済みモデルである正常モデルをグループ別に生成する学習部と、
 グループ別の前記正常モデルを用いて前記設備の状態を検知する状態検知部と、を備える。
 本開示によれば、設備の状態を検知するための学習済みモデルを少ない学習時間および少ない学習データ量で生成することが可能となる。

 図1に基づいて、設備システム200の構成を説明する。
 設備システム200は、設備210と、状態検知システム100と、を備える。
 設備210は、ワークを加工するまたは組み立てるための設備である。設備210には、ワークが流される。ワークは、加工または組み立ての対象となる物である。
 設備210は、制御機器220と、複数の対象機器230と、を備える。
 制御機器220は、工場向けの機器であり、設備210を制御する。例えば、制御機器220は、プログラマブルロジックコントローラ(PLC)である。但し、制御機器220は、一般的なコンピュータであってもよい。
 対象機器230は、制御機器220によって制御される機器であり、各種信号を入出力する。対象機器230の具体例は、センサ231およびアクチュエータ232である。
 制御機器220と状態検知システム100は、互いにネットワーク201を介して接続される。
 制御機器220と各対象機器230は、互いにネットワーク202を介して接続される。
 ネットワーク201およびネットワーク202は、フィールドネットワーク、一般的なネットワークまたは専用の入出力線である。フィールドネットワークの具体例はCC-Linkである。一般的なネットワークの具体例はイーサネット(登録商標)である。
 ネットワーク201とネットワーク202は、同じ種類のネットワークであってもよいし、互いに異なる種類のネットワークであってもよい。
 図2に基づいて、状態検知システム100の構成を説明する。
 状態検知システム100は、プロセッサ101とメモリ102とストレージ103と通信装置104と入出力インタフェース105といったハードウェアを備えるコンピュータである。これらのハードウェアは、信号線を介して互いに接続されている。
 プロセッサ101は、演算処理を行うICであり、他のハードウェアを制御する。例えば、プロセッサ101はCPUである。
 ICは、Integrated Circuitの略称である。
 CPUは、Central Processing Unitの略称である。
 メモリ102は揮発性または不揮発性の記憶装置である。メモリ102は、主記憶装置またはメインメモリとも呼ばれる。例えば、メモリ102はRAMである。メモリ102に記憶されたデータは必要に応じてストレージ103に保存される。
 RAMは、Random Access Memoryの略称である。
 ストレージ103は不揮発性の記憶装置である。例えば、ストレージ103は、ROM、HDD、フラッシュメモリまたはこれらの組み合わせである。ストレージ103に記憶されたデータは必要に応じてストレージ103にロードされる。
 ROMは、Read Only Memoryの略称である。
 HDDは、Hard Disk Driveの略称である。
 通信装置104はレシーバ及びトランスミッタである。例えば、通信装置104は通信ボード、通信チップまたはNICである。状態検知システム100の通信は通信装置104を用いて行われる。
 NICは、Network Interface Cardの略称である。
 入出力インタフェース105は、入力装置および出力装置が接続されるポートである。例えば、入出力インタフェース105はUSB端子である。入力装置の一例はキーボードおよびマウスである。出力装置の一例はディスプレイである。入出力装置の一例はタッチパネルである。状態検知システム100の入出力は入出力インタフェース105を用いて行われる。
 USBは、Universal Serial Busの略称である。
 状態検知システム100は、モデル生成部110と状態検知部120といった要素を備える。これらの要素はソフトウェアで実現される。
 ストレージ103には、モデル生成部110と状態検知部120としてコンピュータを機能させるための状態検知プログラムが記憶されている。状態検知プログラムは、メモリ102にロードされて、プロセッサ101によって実行される。
 ストレージ103には、さらに、OSが記憶されている。OSの少なくとも一部は、メモリ102にロードされて、プロセッサ101によって実行される。
 プロセッサ101は、OSを実行しながら、状態検知プログラムを実行する。
 OSは、Operating Systemの略称である。
 状態検知プログラムの入出力データは記憶部190に記憶される。
 ストレージ103は記憶部190として機能する。但し、メモリ102、プロセッサ101内のレジスタおよびプロセッサ101内のキャッシュメモリなどの記憶装置が、ストレージ103の代わりに、又は、ストレージ103と共に、記憶部190として機能してもよい。
 状態検知システム100は、プロセッサ101を代替する複数のプロセッサを備えてもよい。
 状態検知プログラムは、光ディスクまたはフラッシュメモリ等の不揮発性の記録媒体にコンピュータ読み取り可能に記録(格納)することができる。
 状態検知システム100は、複数のコンピュータで構成されてもよい。
 例えば、状態検知システム100は、モデル生成部110として機能するコンピュータと、状態検知部120として機能するコンピュータと、で構成されてもよい。
 図3に基づいて、モデル生成部110および状態検知部120の構成を説明する。
 モデル生成部110は、収集部111と分割部112と学習部113といった要素を備える。
 状態検知部120は、取得部121と分割部122と予測部123と比較部124と統合部125と検知部126と出力部127といった要素を備える。

 収集データベース191、正常モデルデータベース192、実測データベース193およびグループ情報データ199は、記憶部190に記憶される。

***動作の説明***
 状態検知システム100の動作の手順は状態検知方法に相当する。また、状態検知システム100の動作の手順は状態検知プログラムによる処理の手順に相当する。
 図6に基づいて、状態検知方法を説明する。
 ステップS110において、モデル生成部110は、グループ別の正常モデル301を生成する。
 図7に基づいて、モデル生成処理(S110)の手順を説明する。
 ステップS111において、設備210の状態は正常状態である。「正常」は「定常」と言い換えることができる。
 収集部111は、正常データ311を時系列に収集する。つまり、収集部111は、各時刻の正常データ311を収集する。具体的には、収集部111は、時系列の正常データ311を制御機器220から受信する。
 正常データ311は、正常状態の設備210の稼働データである。
 正常データ311は、複数の正常値を示す。
 正常値は、正常状態の設備210における信号値である。
 稼働データは、設備210の稼働状況を示すデータである。
 稼働データは、複数の信号に対応する複数の信号値を示す。
 複数の信号は、ワークが流される設備210においてワークの流れに応じて順番に反応する。信号の反応は信号値の変化に相当する。
 各信号は、信号識別子によって識別される。
 複数の信号値は、制御機器220によって複数の対象機器230から収集される。具体的には、制御機器220は、複数の信号値を複数の対象機器230から受信する。
 信号値は、対象機器230の入出力信号で示される値である。例えば、信号値は、センサ231によるワークの検知またはアクチュエータ232の状態(オンまたはオフ)を示す。
 各信号値は、信号識別子に対応付けて示される。
 収集部111は、収集された時系列の正常データ311を収集データベース191に記憶する。
 ステップS111は、収集条件が満たされるまで実行される。例えば、ステップS111は、規定データ量の正常データ311が蓄積されるまで実行される。または、ステップS111は、規定時間が経過するまで実行される。
 ステップS111により、グループ別の正常モデル301を生成するために必要な量の正常データ311が収集データベース191に蓄積される。
 蓄積された時系列の正常データ311、すなわち収集された時系列の正常データ311を収集データ312と称する。
 ステップS112において、分割部112は、収集データベース191から収集データ312を取得する。
 そして、分割部112は、収集データ312に含まれる正常値の集合を複数のグループに分ける。
 具体的には、分割部112は、グループ情報データ199に基づいて、正常値の集合を複数のグループに分ける。
 グループ情報データ199は、反応順番にしたがって複数のグループに分けられた複数の信号をグループ別に示す。グループ情報データ199は、記憶部190に予め記憶される。例えば、グループ情報データ199は利用者によって生成される。
 分割部112は、グループ情報データ199に示される複数のグループから正常値に対応する信号が属するグループを選択し、選択されたグループを正常値が属するグループに決定する。
 図8に、上方から見た生産設備240を示す。生産設備240は設備210の一例である。
 図8は、2つのワーク241が生産設備240を流れる様子を示している。

 生産設備240は、ワーク241が流れる順に7つのグループ(1)~(7)に分けられる。複数の信号は、ワーク241の流れに応じて順番に反応する。

 分割部112は、グループ別の正常分割データ313(収集分割データの一例)を生成する。

 状態検知システム100は、学習対象の生産設備を複数の適切なグループに分割し、各グループに機械学習を適用する。
 これにより、対象の生産設備の規模が大きくなり、信号数が増えた場合に、信号間の関係性が複雑になり、必要な学習時間および必要な学習データ量が増える、という課題を解決することが可能になる。
 学習対象の生産設備を複数の適切なグループに分割することで、分割せずに学習する場合と比較して学習対象の動作が単純化される。そして、網羅的な学習データが不要となり、必要な学習時間および必要な学習データ量が少なくなる。
 また、複数の学習済みモデルを並列に実行することで、診断に要する時間の短縮を期待できる。さらに、1個の学習済みモデルで扱う目的変数の数が減るため、学習対象の目的変数に集中して動作を学習しやすくなり、予測精度の向上を期待できる。

 収集データ312が時系列の異常データを含んでもよい。つまり、時系列の正常データ311と時系列の異常データとに基づいて、グループ別の正常モデル301が生成されてもよい。
 まず、収集部111は、設備210の状態が正常状態であるときに正常データ311を時系列に収集し、設備210の状態が異常状態であるときに異常データを時系列に収集する。そして、収集部111は、時系列の正常データ311と時系列の異常データとを収集データ312として収集データベース191に蓄積する。

 各グループにおける先頭の信号が反応してから各グループにおける先頭の信号が次に反応するまでの間、各グループにはワークが1つだけ存在する。つまり、各グループには複数のワークが同時に存在しない。
 複数のワークが同時に存在しない区間が時間帯によって異なる場合、データ解析部130は、各区間が狭い時間帯の収集データ312に基づいてグループ分けを行ってもよい。つまり、決定される複数のグループが時間帯によって異なる場合、データ解析部130は、各グループに属する信号の数が少ない複数のグループを選択してもよい。
 図15に基づいて、信号のグループ分けの例を説明する。
 信号X1が基点信号である。信号X1、信号Y1、信号X2、信号Y2、信号X3の順番に各信号が反応する。
 信号X1が反応してから信号X1が次に反応するまでの間に、信号Y1、信号X2および信号Y2が順番に反応する。一方、信号X3は、信号X1が反応してから信号X1が次に反応するまでの間に反応しない。

Claims (16)

  1.  ワークが流される設備の状態を検知する状態検知システムであり、
     前記ワークの流れに応じて順番に反応する複数の信号の複数の信号値を示す収集データを時系列に収集する収集部と、
     時系列の前記収集データに含まれる前記信号値の集合を複数のグループに分けることによって、グループ内の1つ以上の信号値を時系列に示す収集分割データをグループ別に生成する分割部と、
     グループ別に前記収集分割データを学習データにして機械学習を行うことによって、学習済みモデルである正常モデルをグループ別に生成する学習部と、
     グループ別の前記正常モデルを用いて前記設備の状態を検知する状態検知部と、
    を備える状態検知システム。
  2.  前記複数のグループの中の対象グループの前記正常モデルが、前記対象グループに対する1つ以上の説明変数と、前記対象グループの1つ前のグループである前グループに対する1つ以上の説明変数と、前記対象グループの1つ後のグループである後グループに対する1つ以上の説明変数と、を有し、
     前記学習部は、前記対象グループと前記前グループと前記後グループのそれぞれの前記1つ以上の信号値をそれぞれのグループに対する前記1つ以上の説明変数に設定して前記機械学習を行うことによって、前記対象グループの前記正常モデルを生成する
    請求項1に記載の状態検知システム。
  3.  前記分割部は、反応順番にしたがって前記複数のグループに分けられた前記複数の信号をグループ別に示すグループ情報データに基づいて、前記信号値の集合を前記複数のグループに分ける
    請求項1または請求項2に記載の状態検知システム。
  4.  前記状態検知システムは、
     時系列の前記収集データを解析することによって各グループに属する1つ以上の信号を決定し、各グループに属する1つ以上の信号を示すデータを前記グループ情報データとして生成するデータ解析部を備え、
     前記データ解析部は、
     前記設備において最初に反応する信号を、先頭のグループにおける先頭の信号に決定し、前記先頭のグループにおける前記先頭の信号が反応してから前記先頭のグループにおける前記先頭の信号が次に反応するまでの間に順番に反応する0または1つ以上の信号を、前記先頭のグループに属する信号に決定し、
     1つ前のグループにおける最後の信号の次に反応する信号を、2番目以降の各グループにおける先頭の信号に決定し、
     前記2番目以降の各グループにおける前記先頭の信号が反応してから前記2番目以降の各グループにおける前記先頭の信号が次に反応するまでの間に順番に反応する1つ以上の信号を、前記2番目以降の各グループに属する信号に決定する
    請求項3に記載の状態検知システム。
  5.  前記データ解析部は、
     前記ワークが前記設備に1つだけ流されている間の各時刻の複数の信号値を示す稼働データを収集し、
     各時刻の前記稼働データを解析することによって、信号値が変化した信号の順番を前記複数の信号の前記反応順番として特定し、
     前記複数の信号の前記反応順番を示すデータを信号順番データとして生成し、
     各グループに属する信号を決定するときに、前記信号順番データを参照することによって前記複数の信号の前記反応順番を判定する
    請求項4に記載の状態検知システム。
  6.  前記データ解析部は、
     各グループに属する1つ以上の信号を決定した後にグループの数に基づいてグループを統合するか判定し、
     グループを統合しないと判定した場合、グループを統合せずに、各グループに属する1つ以上の信号を示すデータを前記グループ情報データとして生成し、
     グループを統合すると判定した場合、統合規則にしたがってグループを統合し、統合後の各グループに属する1つ以上の信号を示すデータを前記グループ情報データとして生成する
    請求項4または請求項5に記載の状態検知システム。
  7.  前記状態検知部は、
     前記複数の信号の複数の信号値を複数の実測値として示す実測データを取得し、
     前記実測データの中の前記複数の実測値を前記複数のグループに分けることによって、グループ内の1つ以上の実測値を示す実測分割データをグループ別に生成し、
     グループ別の前記正常モデルを用いて、グループ内の予測の1つ以上の信号値を1つ以上の予測値として示す予測データをグループ別に生成し、
     グループ別に前記実測分割データを前記予測データと比較し、グループ別に比較結果データを生成し、
     グループ別の前記比較結果データを統合して統合結果データを生成し、
     前記統合結果データに基づいて前記設備の状態を検知する
    請求項1に記載の状態検知システム。
  8.  前記複数のグループの中の対象グループの前記正常モデルが、前記対象グループに対する1つ以上の説明変数と、前記対象グループの1つ前のグループである前グループに対する1つ以上の説明変数と、前記対象グループの1つ後のグループである後グループに対する1つ以上の説明変数と、を有し、
     前記学習部は、前記対象グループと前記前グループと前記後グループのそれぞれの前記1つ以上の信号値をそれぞれのグループに対する前記1つ以上の説明変数に設定して前記機械学習を行うことによって、前記対象グループの前記正常モデルを生成し、
     前記状態検知部は、前記対象グループと前記前グループと前記後グループのそれぞれの前回の前記1つ以上の実測値をそれぞれのグループに対する前記1つ以上の説明変数に設定して前記対象グループの前記正常モデルを演算することによって、前記対象グループの前記1つ以上の予測値を算出する
    請求項7に記載の状態検知システム。
  9.  前記分割部は、反応順番にしたがって複数のグループに分けられた前記複数の信号をグループ別に示すグループ情報データに基づいて、前記信号値の集合を前記複数のグループに分け、
     前記状態検知部は、前記グループ情報データに基づいて、前記複数の実測値を前記複数のグループに分ける
    請求項7または請求項8に記載の状態検知システム。
  10.  前記状態検知システムは、
     時系列の前記収集データを解析することによって各グループに属する信号を決定し、各グループに属する信号を示すデータを前記グループ情報データとして生成するデータ解析部を備え、
     前記データ解析部は、
     前記設備において最初に反応する信号を、先頭のグループにおける先頭の信号に決定し、前記先頭のグループにおける前記先頭の信号が反応してから前記先頭のグループにおける前記先頭の信号が次に反応するまでの間に順番に反応する0または1つ以上の信号を、前記先頭のグループに属する信号に決定し、
     1つ前のグループにおける最後の信号の次に反応する信号を、2番目以降の各グループにおける先頭の信号に決定し、
     前記2番目以降の各グループにおける前記先頭の信号が反応してから前記2番目以降の各グループにおける前記先頭の信号が次に反応するまでの間に順番に反応する1つ以上の信号を、前記2番目以降の各グループに属する信号に決定する
    請求項9に記載の状態検知システム。
  11.  前記データ解析部は、
     前記ワークが前記設備に1つだけ流されている間の各時刻の複数の信号値を示す稼働データを収集し、
     各時刻の前記稼働データを解析することによって、信号値が変化した信号の順番を前記複数の信号の前記反応順番として特定し、
     前記複数の信号の前記反応順番を示すデータを信号順番データとして生成し、
     各グループに属する信号を決定するときに、前記信号順番データを参照することによって前記複数の信号の前記反応順番を判定する
    請求項10に記載の状態検知システム。
  12.  前記データ解析部は、
     各グループに属する信号を決定した後にグループの数に基づいてグループを統合するか判定し、
     グループを統合しないと判定した場合、グループを統合せずに、各グループに属する信号を示すデータを前記グループ情報データとして生成し、
     グループを統合すると判定した場合、統合規則にしたがってグループを統合し、統合後の各グループに属する信号を示すデータを前記グループ情報データとして生成する
    請求項10または請求項11に記載の状態検知システム。
  13.  前記状態検知システムは、精度評価部を備え、
     前記状態検知部は、グループ別の前記比較結果データに基づいてグループ別に状態を検知し、正常状態のグループ別に前記比較結果データに基づいて前記1つ以上の予測値の異常度を算出し、正常状態のグループ別に前記異常度を示す異常度データを生成し、
     前記精度評価部は、グループ別の前記異常度データに基づいて、精度が悪化したと推測される前記正常モデルに対応するグループを悪化グループとして特定し、
     前記学習部は、前記悪化グループに対する前記機械学習を行うことによって、前記悪化グループの前記正常モデルを更新する
    請求項7から請求項12のいずれか1項に記載の状態検知システム。
  14.  前記学習部は、精度が悪化したと推測される前記正常モデルに対応する悪化グループの指定を受け付け、前記悪化グループに対する前記機械学習を行うことによって前記悪化グループの前記正常モデルを更新する
    請求項1から請求項6のいずれか1項に記載の状態検知システム。
  15.  ワークが流される設備の状態を検知する状態検知方法であり、
     前記ワークの流れに応じて順番に反応する複数の信号の複数の信号値を示す収集データを時系列に収集し、
     時系列の前記収集データに含まれる前記信号値の集合を複数のグループに分けることによって、グループ内の1つ以上の信号値を時系列に示す収集分割データをグループ別に生成し、
     グループ別に前記収集分割データを学習データにして機械学習を行うことによって、学習済みモデルである正常モデルをグループ別に生成し、
     グループ別の前記正常モデルを用いて前記設備の状態を検知する
    状態検知方法。
  16.  ワークが流される設備の状態を検知するための状態検知プログラムであり、
     前記ワークの流れに応じて順番に反応する複数の信号の複数の信号値を示す収集データを時系列に収集する収集処理と、
     時系列の前記収集データに含まれる前記信号値の集合を複数のグループに分けることによって、グループ内の1つ以上の信号値を時系列に示す収集分割データをグループ別に生成する分割処理と、
     グループ別に前記収集分割データを学習データにして機械学習を行うことによって、学習済みモデルである正常モデルをグループ別に生成する学習処理と、
     グループ別の前記正常モデルを用いて前記設備の状態を検知する状態検知処理と、
    をコンピュータに実行させるための状態検知プログラム。
