The decoder is mainly used for up-sampling the second characteristics corresponding to each time point obtained by ConvLSTM to obtain the final oil reservoir distribution. and finally, inputting the output characteristics of the plurality of second Fourier operators into the fourth convolution layer for characteristic extraction to obtain the oil reservoir distribution of the corresponding time point. The fourth convolution layer comprises 2 and 3 layers3, number of parameters is 233。
In addition, the fourier nerve operators in the encoder and the decoder are multiple, so that the down-sampling, the feature extraction and the up-sampling are performed step by step, and the excessive information loss is avoided.
In the embodiment, the reservoir control equation is simulated by using a mode of combining the Fourier operator and the neural network, and because the derivation process of solving the Fourier operator is completely carried out according to the solution of the partial differential equation, the method is more consistent with the process of numerical solution and has higher prediction precision; and because the convolution used in the data space is less, the calculation speed is faster; in addition, the method can predict the pressure and the saturation at the same time, and does not need to predict the pressure and the saturation twice, so that the prediction efficiency is further improved. Based on the simulation result of the full physical model, the average relative error of the method in the aspects of pressure and saturation prediction is 4.1 percent and 2.1 percent, 0.2s is needed for completing one-time prediction, and the prediction results of the pressure and the saturation are obtained at one time.
In particular, the present embodiment implements data upsampling and downsampling while evolving features in fourier space using fourier transforms with different input and output dimensions in the encoder and decoder. The method is particularly suitable for scenes taking certain geological condition distribution (embodied as permeability distribution) as a prediction premise, and the permeability fields are different due to the change of geological conditions and need to be adjusted through terrain fitting, so that the characteristic extraction, the up-sampling and the down-sampling processes are integrated into the same operation, the calculated amount can be reduced, the fitting of different geological condition distribution is facilitated, and the application range of the model is improved.
Optionally, resNet or densnet is also included before and after ConvLSTM to improve model performance. For example, based directly on the last layer output of the fourier, a convolution of 3 × 3 is used for the calculation, and 3 layers of ReseNet or densnet are used.
On the basis of the above embodiment and the following embodiment, the present embodiment refines the training process of the entire model. Optionally, before the trained encoder extracts the first feature of the current permeability distribution, the method further includes the following steps:
first, a plurality of examples of different permeability distributions are randomly generated, and LandSim simulation is adoptedThe software simulates the examples and extracts the pressure distribution, saturation distribution and well oil and water production. As shown at 191 in FIG. 53137, a plurality of samples with different permeabilities are randomly generated on the basis of the 3D actual sample, and software simulation and data extraction are carried out.
The extracted data is then normalized and divided into a training set and a test set. Optionally, the data is normalized by a maximum and minimum method, and the normalized data is normalized according to the ratio of 8:2 into training and test sets.
Meanwhile, in order to better adjust the importance of each part of output, the present embodiment divides the total loss function into two parts, namely pressure loss and saturation, calculates the pressure loss by using a 1 norm, calculates the saturation loss by using a 2 norm, and constructs the following loss function:

And finally, training a deep learning model formed by the encoder, the convolution long-time and short-time memory neural network and the decoder by using the training samples and the loss function. Specifically, the number of epochs is 100 by adopting an ADAM optimizer, the initial learning rate is 0.0002, and the learning rate is attenuated to 0.8 times of the original learning rate every 10 epochs.
And after the training is finished, the model parameters are stored as corresponding model files. In the prediction stage, a model is loaded, then the initial permeability field of the oil reservoir is used as input, the distribution of pressure and saturation at a series of moments is obtained through model calculation, and further the relevant information of the well is calculated.
According to the embodiment, large-scale actual oil field data are used as samples, an oil reservoir prediction model based on the Fourier neural operator and the circulating neural network is trained, and model accuracy is improved. The model uses less convolution in the data space and the training speed is faster. Compared with other technical schemes, the model can achieve better precision and higher speed.
Fig. 6 is a schematic structural diagram of an electronic device according to an embodiment of the present invention, as shown in fig. 6, the electronic device includes a processor 50, a memory 51, an input device 52, and an output device 53; the number of processors 50 in the device may be one or more, and one processor 50 is taken as an example in fig. 6; the processor 50, the memory 51, the input device 52 and the output device 53 in the apparatus may be connected by a bus or other means, as exemplified by the bus connection in fig. 6.
The memory 51 is a computer-readable storage medium, and can be used for storing software programs, computer-executable programs, and modules, such as program instructions/modules corresponding to the method, device, and storage medium for determining parameters and predicting concentration of orthotropic plates of steel box girders in the embodiments of the present invention. The processor 50 executes various functional applications and data processing of the device by running software programs, instructions and modules stored in the memory 51, namely, the method, the device and the storage medium for determining the steel box girder orthotropic plate parameters and predicting the concentration are realized.
The memory 51 may mainly include a storage program area and a storage data area, wherein the storage program area may store an operating system, an application program required for at least one function; the storage data area may store data created according to the use of the terminal, and the like. Further, the memory 51 may include high speed random access memory, and may also include non-volatile memory, such as at least one magnetic disk storage device, flash memory device, or other non-volatile solid state storage device. In some examples, the memory 51 may further include memory located remotely from the processor 50, which may be connected to the device over a network. Examples of such networks include, but are not limited to, the internet, intranets, local area networks, mobile communication networks, and combinations thereof.
The input device 52 is operable to receive input numeric or character information and to generate key signal inputs relating to user settings and function controls of the apparatus. The output device 53 may include a display device such as a display screen.
The embodiment of the invention also provides a computer readable storage medium, wherein a computer program is stored on the computer readable storage medium, and when the computer program is executed by a processor, the method, the equipment and the storage medium for determining the steel box girder orthotropic plate parameters and predicting the concentration of the steel box girder orthotropic plate of any embodiment are realized.
Computer storage media for embodiments of the invention may employ any combination of one or more computer-readable media. The computer readable medium may be a computer readable signal medium or a computer readable storage medium. A computer readable storage medium may be, for example, but not limited to, an electronic, magnetic, optical, electromagnetic, infrared, or semiconductor system, apparatus, or device, or any combination of the foregoing. More specific examples (a non-exhaustive list) of the computer readable storage medium would include the following: an electrical connection having one or more wires, a portable computer diskette, a hard disk, a Random Access Memory (RAM), a read-only memory (ROM), an erasable programmable read-only memory (EPROM or flash memory), an optical fiber, a portable compact disc read-only memory (CD-ROM), an optical storage device, a magnetic storage device, or any suitable combination of the foregoing. In the context of this document, a computer readable storage medium may be any tangible medium that can contain, or store a program for use by or in connection with an instruction execution system, apparatus, or device.
A computer readable signal medium may include a propagated data signal with computer readable program code embodied therein, for example, in baseband or as part of a carrier wave. Such a propagated data signal may take many forms, including, but not limited to, electro-magnetic, optical, or any suitable combination thereof. A computer readable signal medium may also be any computer readable medium that is not a computer readable storage medium and that can communicate, propagate, or transport a program for use by or in connection with an instruction execution system, apparatus, or device.
Program code embodied on a computer readable medium may be transmitted using any appropriate medium, including but not limited to wireless, wireline, optical fiber cable, RF, etc., or any suitable combination of the foregoing. Computer program code for carrying out operations for aspects of the present invention may be written in any combination of one or more programming languages, including an object oriented programming language such as Java, smalltalk, C + +, or the like, as well as conventional procedural programming languages, such as the "C" programming language or similar programming languages. The program code may execute entirely on the user's computer, partly on the user's computer, as a stand-alone software package, partly on the user's computer and partly on a remote computer or entirely on the remote computer or server. Claims (10)
1. A reservoir prediction method based on Fourier neural operators and a recurrent neural network is characterized by comprising the following steps:
acquiring current permeability distribution of a target area;
extracting a first characteristic of the current permeability distribution through a trained encoder, wherein the encoder comprises a first convolutional layer, a plurality of first Fourier operators and a second convolutional layer which are sequentially connected;
carrying out evolution on the time dimension based on the first characteristics by a trained convolution long-time memory neural network to obtain second characteristics of a plurality of time points in the future, wherein each second characteristic is used for representing the oil deposit distribution characteristics of the corresponding time point;
and restoring each second characteristic into the oil reservoir distribution of the corresponding time point through a trained decoder, wherein the decoder comprises a third convolution layer, a plurality of second Fourier nerve operators and a fourth convolution layer which are connected in sequence.
2. The method of claim 1, wherein the reservoir profile comprises at least one of: oil phase pressure distribution, oil phase saturation distribution, water phase pressure distribution and water phase saturation distribution.
3. The method of claim 1, wherein the permeability distribution and the reservoir distribution refer to a two-dimensional geographic distribution, wherein the number of two-dimensional geographic grids is any number.
4. The method of claim 1, wherein extracting, by the trained encoder, the first feature of the current permeability distribution comprises:
inputting the current permeability distribution into the first convolution layer for feature extraction to obtain initial features;
inputting the initial features into the plurality of first Fourier nerve operators, gradually reducing dimensions in a Fourier space and extracting depth features, wherein the iteration process of each first Fourier nerve operator is as follows:

The method of claim 4, wherein the current permeability distribution is a tensor of [ M, X, Y,1], M representing the number of examples, X and Y representing the number of grids of the target area in two perpendicular directions parallel to the ground, respectively; there are 3 of the first Fourier operators;
the first coiled layer comprises 32 and 33, after the current permeability distribution is calculated by the first convolution layer, the obtained initial characteristic dimension is [ M, X, Y,64 ]];

6. The method of claim 1, wherein the restoring, by the trained decoder, each second feature to the reservoir distribution at the corresponding time point comprises:
inputting each second feature into the third convolutional layer for feature extraction;
inputting the output features of the third convolutional layer into the plurality of second fourier neural operators, and performing dimension lifting and feature evolution gradually in a fourier space, wherein an iterative process of each second fourier neural operator comprises: adopting interpolation up-sampling to change the dimension of the output characteristic into 2 times of the input characteristic, and adopting Fourier transform and inverse Fourier transform to evolve the up-sampled characteristic;
and inputting the output characteristics of the plurality of second Fourier nerve operators into the fourth convolution layer for characteristic extraction, so as to obtain the oil reservoir distribution of the corresponding time point.
7. The method of claim 6, wherein the permeability distribution is a tensor of [ M, X, Y,1], each second feature is a tensor of [ M, X/8,Y/8,32], M represents an arithmetic number, and X and Y represent the number of meshes of the target area in two perpendicular directions parallel to the ground, respectively; 3 of the second Fourier operators;
the fourth convolutional layer comprises 64 3 with step size 13 convolution kernel with parameter number of 6433, after each second feature passes through the fourth convolution layer, the dimension of the output feature is [ M, X/8,Y/8,64];

8. The method of claim 1, wherein prior to said extracting, by the trained encoder, the first feature of the current permeability distribution, further comprising:
randomly generating a plurality of examples with different permeability distributions, simulating the examples by using LandSim simulation software, and extracting pressure distribution, saturation distribution and oil and water production of a well;
normalizing the extracted data, and dividing the normalized data into a training set and a test set;
the following loss function was constructed:

when executed by the one or more processors, cause the one or more processors to implement the method for reservoir prediction based on fourier neural operators and cyclic neural networks as recited in any of claims 1-8.
10. A computer-readable storage medium, on which a computer program is stored which, when being executed by a processor, carries out the method for reservoir prediction based on fourier neural operators and recurrent neural networks as claimed in any one of claims 1 to 8.
