Detailed Description
In the present disclosure, unless otherwise specified, the use of the terms "first", "second", etc. to describe various elements is not intended to define a positional relationship, a temporal relationship, or an importance relationship of the elements, and such terms are used only to distinguish one element from another. In some examples, a first element and a second element may refer to the same instance of the element, while in some cases they may refer to different instances based on the context of the description.
The terminology used in the description of the various described examples in this disclosure is for the purpose of describing the particular examples only and is not intended to be limiting. Unless the context clearly indicates otherwise, if the number of elements is not specifically limited, the element may be one or a plurality of. Furthermore, the term "and/or" as used in this disclosure is intended to encompass any and all possible combinations of the listed items.
In the related art, as shown in fig. 1, a vehicle data model is usually trained by integrating local data reported by each vehicle at a back end of a server (for example, by integrating local data reported by each vehicle, such as vehicle 1, vehicle 2 to vehicle n, on a central database platform shown in fig. 1), and then training the integrated data. In this way, because the amount of data reported by the vehicle is large, for example, there are likely to be original local data reported by hundreds of vehicles, there are problems of high requirements for communication bandwidth, backend data storage and processing resources, long training time, and the like. In addition, each vehicle uploads the original local data to a server and the like, and the privacy of the user is leaked in the data transmission process, so that the privacy of the user cannot be well protected, and the like.
In view of this, the present disclosure provides a training method of a vehicle data model. FIG. 2 shows a flow diagram of a method of training a vehicle data model, which, as shown in FIG. 2, may include:
step S201: acquiring local data of a vehicle;
step S202: training a local model of the vehicle according to the acquired local data of the vehicle to obtain a first local model update parameter of the vehicle;
step S203: performing matrix estimation on the first local model updating parameter to obtain a second local model updating parameter with reduced parameter scale; and
step S204: and sending the second local model update parameters to a server, so that the server integrates the update parameters based on the second local model update parameters reported by each vehicle and feeds the integrated update parameters back to each vehicle.
When training the vehicle data model, vehicle data can be trained locally in the vehicle, and then corresponding update parameters are sent to the rear ends of the server and the like for summarizing or integrating (for example, as shown in fig. 3, the vehicle 1, the vehicle 2 to the vehicle n can train the local model of the vehicle based on local data of the vehicle first, and then send update parameters obtained by training to the rear end for integrating the update parameters), and the sent update parameters are update parameters with reduced parameter scales (for example, the scale is much smaller than that of the original local data of the vehicle) obtained by matrix estimation of the original update parameters obtained by local training, so that even under the condition that network connection is unreliable, communication overhead with the rear end can be greatly reduced, occupied data storage and processing resources of the rear end are reduced, thereby reducing expenditure, shortening development cycle, and improving robustness of the aggregated model. In addition, each vehicle participating in the training of the vehicle data model does not need to upload original local data of each vehicle to a server and other back ends, so that the problem of privacy disclosure of a user can be avoided, the data privacy of the user can be well protected, and the application experience of the user is improved.
Further, it is understood that the vehicle data model training methods described in the present disclosure may employ various statistical and machine learning methods, including, but not limited to, one or more of neural network modeling methods (e.g., stochastic gradient descent or Adam optimization methods), support vector machines, graph networks, extreme gradient enhancement trees, and the like.
The steps of the training method of the vehicle data model according to the exemplary embodiment of the present disclosure will be described in detail with reference to fig. 2 and 3.
According to some embodiments, the local data of the vehicle acquired in step S201 includes one or more of vehicle driving behavior data, vehicle driving state data, and vehicle fault data.
According to some embodiments, the vehicle driving behavior data comprises data relating to a steering behavior of the vehicle by the driver, wherein the steering behavior comprises one or more of: steering wheel, brake pedal, and accelerator pedal. The vehicle driving state data includes one or more of the following data: travel speed, travel trajectory, travel time, travel direction, acceleration, angular velocity, wheel steering angle, gear state, and the like. The vehicle fault data includes one or more of a number of times a fault occurred, a component that failed (e.g., an engine, a brake, a transmission, or a clutch), and the like.
According to some embodiments, local data of the vehicle may be acquired (e.g., collected) by various sensors in the vehicle. For example, taking the example of collecting vehicle driving behavior data, the sensors used include, but are not limited to: an angle sensor for detecting the angle of rotation of the steering wheel, a displacement sensor or an acceleration sensor for detecting the displacement of the brake pedal and/or the accelerator pedal, and/or a force sensor for detecting the force on the brake pedal and/or the accelerator pedal, etc.
In addition, it is understood that the vehicle in the present disclosure includes a motor vehicle having an automatic driving function, and for example, may include an unmanned vehicle, and other various motor vehicles having and having been switched to the automatic driving function. Among others, the unmanned Vehicle may include a private unmanned Vehicle, a Vehicle for providing an automated Vehicle Mobility as a Service, and the like.
According to some embodiments, the local model of the vehicle on which the local training in step S202 is based may be pre-acquired by the vehicle from a server or pre-deployed by the server for the vehicle. It is understood that, in the present disclosure, the local models of the vehicles participating in the training of the vehicle data model have a unified model structure (for example, the initial local model of each vehicle is a unified model obtained in advance from the server, or a unified model deployed for each vehicle in advance by the server), so as to implement the corresponding lateral federal learning mechanism. In addition, the local model of the vehicle may be a model used for one or more of various purposes such as automatic driving, driving behavior analysis, and early failure prediction, depending on actual needs.
According to some embodiments, in step S202, the vehicle may train the current local model of the vehicle according to the acquired local data to obtain a trained local model, and obtain a first local model update parameter of the vehicle based on the trained local model and the local model before the current training. For example, with the current local model of vehicle i as W t (where t may represent the current cycle of model training, e.g., federal learning), and the local model after training, resulting from training the local model based on local data, is W i t For example, the obtained first local model update parameter H of the vehicle i i t Can be expressed as: h i t =W i t –W t
According to some embodiments, in step S203, performing matrix estimation on the first local model update parameter to obtain a second local model update parameter with a reduced parameter size, includes:
decomposing the first local model update parameter into a product of two low-order matrices (which may also be referred to as low-rank matrices or small-rank matrices) based on a matrix decomposition algorithm; and taking one matrix of the two low-order matrixes with updated parameters in the local model training process as a second local model updating parameter with reduced parameter scale.
Illustratively, the first local model update parameter of vehicle i is H i t For example, assume H i t Matrix R in d1 by d2 dimensions d1xd2 Then H can be substituted i t Decomposition into A i t And B i t Product of (i.e. H) i t =A i t B i t Wherein A is i t Matrix R which can be d1 by k dimensions d1 x k ,B i t Matrix R which can be k by d2 dimensions k x d2 And wherein the values of d1, d2 and k can be set according to practical conditions, generally speaking, the values of d1 and d2 are related to vehicle data based on model training, and the value of k can be smaller than d1 and d2 to satisfy the relation a i t And B i t Is a requirement for a low order matrix.
Assume a low order matrix A i t Considered constant (i.e., remaining unchanged) during the local model training process, another matrix B with updated parameters during the local model training process may be used i t (i.e., the matrix that is constantly optimized during the local model training process) as a second local model update parameter with reduced parameter size to send to the corresponding server.
Therefore, the sent updated parameters are the parameters obtained by decomposing the low-order matrix of the original updated parameters obtained by local training through the matrix decomposition algorithm, and the parameter scale is far smaller than the scale of the original local data of the vehicle, so that the communication overhead with the back end can be greatly reduced, the occupied data storage and processing resources of the back end are reduced, the expenditure can be reduced, and the development period can be shortened. Illustratively, to form the above-mentioned matrix B i t Sending to the server for example, can saveSaving a communication factor of approximately d 1/k.
According to other embodiments, in step S203, performing matrix estimation on the first local model update parameter to obtain a second local model update parameter with a reduced parameter size includes:
based on a random mask mode, constraining the first local model updating parameter to be a random sparse matrix; and taking the updated non-zero elements in the random sparse matrix and the seeds for generating the random sparse matrix as the updated parameters of the second local model with the reduced parameter scale.
Therefore, the effect of saving a large amount of transmission resources, storage resources, operation resources and operation time by using the zero elements in the random sparse matrix can be achieved, so that the communication overhead with the back end can be greatly reduced, the occupied data storage and processing resources of the back end are reduced, the expenditure can be reduced, and the development period can be shortened.
According to some embodiments, before sending the second local model update parameter to a server, the method further comprises: compressing (also referred to as compression encoding) the second local model update parameters. Therefore, the size of the transmitted parameters can be further reduced, so that the transmission resources are saved, and the communication overhead with the back end is reduced.
According to some embodiments, compressing the second local model update parameters comprises: compressing the second local model update parameters based on a probabilistic quantization (probabilistic quantization).
According to some embodiments, each scalar h in the parameters may be updated by updating the second local model j The second local model update parameter is compressed by quantization to 1bit, and the compressed scalar can be expressed as
Figure BDA0003015696280000071
Figure BDA0003015696280000072
According to some embodiments, the second local model update parameters may also be compressed by quantizing each scalar in the second local model update parameters to b bits (b being a positive integer greater than 1). For this, the above equation regarding 1-bit quantization can be generalized to b-bit quantization as follows: mixing [ hmin, hmax]Equally divided into 2b intervals, let h j Falling within one of the intervals defined by h 'and h ", the scalar h can be scaled by replacing hmin and hmax in the above equation with h' and h", respectively j Quantization is performed.
It is to be understood that, in addition to the above-mentioned 1-bit quantization or b-bit quantization equal probability quantization method for compressing the second local model update parameter, the second local model update parameter may be compressed in other manners. In addition, in addition to compressing the second local model update parameters, the first local model update parameters may also be compressed, for example, before matrix estimation of the first local model update parameters.
According to some embodiments, prior to compressing the second local model update parameters, the method further comprises: and carrying out random rotation processing on the second local model updating parameter so as to reduce the error of subsequent compression, such as compression based on a probability quantization mode.
According to some embodiments, randomly rotating the second local model update parameters comprises: and multiplying the second local model updating parameter by a random orthogonal matrix to realize random rotation processing of the second local model updating parameter. The random orthogonal matrix may be generated in various manners in the related art, which is not limited in this regard.
According to some embodiments, the training method of the vehicle data model of the present disclosure further comprises:
updating the local model based on the integrated updated parameters from the server (e.g., as shown in fig. 3, the integrated updated parameters are transmitted back to vehicles 1-n for updating of the respective local models);
determining whether a model training end condition of the vehicle data model has been satisfied;
responding to that the model training end condition is not met, training the updated local model based on the local data again to obtain a new second local model updating parameter, and sending the new second local model updating parameter to the server for updating parameter integration; and in response to the model training end condition being met, taking the updated local model as a vehicle data model required by the vehicle.
According to some embodiments, the model training end condition includes one or more of a number of iterations of the local model reaching a set number threshold (which may be set according to actual conditions) and a loss function convergence of the local model.
According to the method of the exemplary embodiment of the disclosure, when training the vehicle data model, vehicle data may be trained locally in the vehicle first, and then corresponding update parameters may be sent to a server and other backend for summarizing or integrating (for example, as shown in fig. 3, the vehicle 1, the vehicle 2 to the vehicle n may train the local model of the vehicle based on the local data of the vehicle first, and then send the update parameters obtained by training to the backend for integrating the update parameters), and the sent update parameters are update parameters with reduced parameter scales (for example, scales much smaller than the original local data of the vehicle) obtained by performing matrix estimation on the original update parameters obtained by local training, so that even in the case of unreliable network connection, the communication overhead with the backend can be greatly reduced, occupied data storage and processing resources of the backend are reduced, thereby reducing expenses, shortening the development cycle, and improving robustness of the aggregated model. In addition, because each vehicle participating in the training of the vehicle data model does not need to upload original local data of the vehicle to a server and other back ends, the problem of user privacy disclosure can be avoided, the data privacy of the user can be well protected, and the application experience of the user is improved.
