Abstract
本发明公开了一种基于数据挖掘的污水处理厂甲烷产量预测方法,涉及污水处理中甲烷生产技术领域。本发明分析污水的厌氧消化过程,以污水处理厂的数据为基础,采用数据挖掘算法建立甲烷产量预测模型,该模型能够很好地预测甲烷产量。本发明使用boosting‑tree算法对模型参数进行选择,采用ANFIS算法建立甲烷产量预测模型,在5个评价指标的基础上,对预测模型的性能进行了全面的测试和评价。输入数据简化,节省了数据训练时间,预测精度较高。

技术领域
本发明涉及污水处理中甲烷生产技术领域,具体涉及一种基于数据挖掘的污水处理厂甲烷产量预测方法。
背景技术
厌氧消化是一种生物过程,在没有氧气的情况下,有机物被分解成甲烷、二氧化碳和污泥等可燃气体。这种沼气技术为污水处理提供了一种解决方案,它允许通过厌氧消化过程将人、动物和城市垃圾转化为甲烷。厌氧消化是中大型污水处理设施中常用的污泥处理技术。为了获得稳定的甲烷产量,必须对厌氧消化过程进行监控。而通过现有实测数据来提前预测下一段时间内的甲烷产量,根据预测数据可有效优化现有过程,增大甲烷产量。
但开发消化过程的分析模型是困难的,因为这一过程涉及生物、化学和物理反应。由于控制厌氧过程的复杂机制尚不完全清楚,因此开发废水处理设施的甲烷产量预测模型具有挑战性。
国内外学者对甲烷产量预测方法多有研究,其现有方法主要包括模糊神经网络、支持向量机、神经网络及混合算法等。以往的预测算法往往需要根据专业人士的先验知识选取输入特征中有用的信息,去掉冗余的信息。且传统的模型训练方式的周期较长,精确度不高。
发明内容
本发明的目的在于提供一种基于数据挖掘的污水处理厂甲烷产量预测方法,解决现有预测方法过于依赖经验、训练周期长、精确度低的问题。
为解决上述的技术问题,本发明采用以下技术方案:一种基于数据挖掘的污水处理厂甲烷产量预测方法,其特征在于包括如下步骤:
S1、获取污水处理厂的甲烷生产数据并进行预处理,其中生产数据包括污泥流量、总固体、挥发性负荷、有机负荷、滞留时间、污泥滞留时间、厌氧消化器温度和甲烷产量;
S2、对甲烷生产数据进行参数选择,选择出对训练数据集预测精度影响较大的重要参数;
S3、将参数筛选后的数据输入到训练网络当中,训练网络采用自适应神经模糊推理算法ANFIS搭建,训练网络对筛选的数据进行数据训练并构建模糊推理系统,得到预测模型;
S4、将测试数据集数据输入到预测模型,得到甲烷产量的预测结果。
更进一步的技术方案是所述步骤S1获取的生产数据选自爱荷华州德梅因市的废水回收设施(WRA)的甲烷生产数据,将获取的数据随机取577个组成训练数据集,余下的148个数据组成测试数据集。
更进一步的技术方案是所述步骤S1中预处理包括数据清理、变换,使用众数填补空缺值,平滑噪声数据,识别并删除孤立点。
更进一步的技术方案是所述步骤S2中的参数选择方法采用boosting-tree算法,算法初始化时,每个训练样本的权重均等于训练样本数量的倒数,设最大迭代次数为200;将步骤S2中的参数输入到boosting-tree算法中,得到每个参数对训练数据集预测精度的贡献,得到参数的重要性并进行排序分析,合理设定阈值进行筛选。
更进一步的技术方案是所述步骤S3具体为将参数筛选后的数据输入到训练网络当中,训练网络采用自适应神经模糊推理算法ANFIS搭建;在建立预测模型的ANFIS算法的第一次运行中,使用九条规则进行训练和测试,利用减法聚类模糊推理系统生成ANFIS结构;用于构建ANFIS结构的参数如下:压缩因子为1.25,接收比为0.5,拒绝比为0.15,影响范围为0.5,最大训练时段设置为200,选取的七个参数用九个标记为MF1到MF9的高斯隶属函数进行模糊化处理,对于每个输入参数,有九个输入成员函数。
与现有技术相比,本发明的有益效果是:本方法在甲烷生产数据基础上应用合理算法,使用boosting-tree算法对模型参数进行选择,采用ANFIS算法建立甲烷产量预测模型,选择相应的工艺参数,降低了输入的维数,节省了数据的训练时间。与神经网络(NN)、支持向量机(SVM)、随机森林树和k近邻数据挖掘算法构建甲烷产量的预测模型相比,采用自适应神经模糊推理系统算法建立的甲烷生产预测模型预测精度更高。

为了使本发明的目的、技术方案及优点更加清楚明白,以下结合附图及实施例,对发明进行进一步详细说明。应当理解,此处所描述的具体实施例仅仅用以解释本发明,并不用于限定本发明。
实施例
一种基于数据挖掘的污水处理厂甲烷产量预测方法具体实施步骤如下:
S1、数据获取
甲烷生产数据选自爱荷华州德梅因市的废水回收设施(WRA)的甲烷生产数据,WRA包括初步处理设施、6个一级澄清池、12个粗滤器、6个曝气池、12个最终澄清池、2个氯接触池、3个转鼓过滤器(RDF)、6个厌氧消化池、固体处理和处理、生物固体处理和8个生物过滤器,可控制异味。
将数据集分成两部分,第一部分数据集1有577个数据点,用于通过数据挖掘算法训练和开发预测模型,另一部分数据集2有148个数据点,用于测试我们从数据集1导出的模型的预测性能,如表1所示。

对获取的数据进行预处理,包括数据清理、变换等,使用众数填补空缺值,平滑噪声数据,识别并删除孤立点。
S2、参数筛选
数据集包含参数为污泥流量、总固体、挥发性负荷、有机负荷、滞留时间、污泥滞留时间(SRT)、厌氧消化器1温度、厌氧消化器2温度和甲烷产量。其中一些参数很重要,因为它们相互影响。考虑到对于甲烷产量预测问题,选择较少的特征量能够有效减少模型训练周期,同时为了提高预测精度,采用boosting-tree算法减少参数个数。算法初始化时,每个训练样本的权重均等于训练样本数量的倒数,设最大迭代次数为200;将步骤S2中的参数输入到boosting-tree算法中,经过boosting-tree算法计算,得到各个参数的重要性指数,如表2所示。
表2列出了每个输入参数的重要性指数。选择参数的阈值设置为0.7。根据表2,污泥滞留时间参数的重要性低于阈值,且对消化过程影响较小,故将其去除。

S3、ANFIS建模
自适应神经模糊推理算法(ANFIS)将模糊逻辑单元和神经网络有机结合,采用混合学习算法识别ANFIS参数,采用最小二乘估计和反向传播相结合的方法进行隶属函数参数估计。
自适应神经模糊推理系统架构一般由五层构成。第一层为模糊化层,第一层中每个节点对应的输入模糊隶属度表达式为:

式中:x和y分别表示第i个节点的输入。O1,i为模糊隶属度,μAi和μBi-2通常是最大值等于1,最小值等于0的钟形函数。其中,μAi对应表达式为:
式中:表示隶属函数的对应参数,隶属函数中的参数将通过训练来确定。
第二层为规则推理层(Rule Layer),这一层需要计算各条规则的激励强度,激励强度表达式为:

第三层称为归一化层(Normalization layer),该层主要作用是将各个规则的激励强度归一化,归一化层输出结果的表达式为:
第四层称作模糊化层(Defuzzification layer),该层计算每条规则的输出,通过计算各个规则的加权结果值体现每个规则对总体输出的贡献,其输出表达式为:

最后一层为输出层(Summation Layer),输出层需计算所有节点总和,模型输出表达式为:
ANFIS将Sugeno-模糊推理系统集成到自适应神经网络结构中。网络可以看作是由输入组成的,输入层有N个神经元,每个输入有F个输入隶属函数,模糊化层有FN个神经元。在推理层和去模糊层都有FN规则,输出层只有一个神经元。
Matlab 10.0(MathWorks,Inc.)中的工具箱功能ANFIS用于构建预测模型。将参数筛选后的数据输入到训练网络当中,训练网络采用自适应神经模糊推理算法(ANFIS)搭建,在建立预测模型的ANFIS算法的第一次运行中,使用了九条规则进行训练和测试。利用减法聚类模糊推理系统生成ANFIS结构。本文用于构建ANFIS结构的参数如下:压缩因子为1.25,接收比为0.5,拒绝比为0.15,影响范围为0.5。提供的这些默认值产生了性能良好的ANFIS。为了获得最小RMSE,最大训练时段设置为200。如果达到指定的纪元数,则停止训练过程。本文选取的七个参数用九个标记为MF1到MF9的高斯隶属函数进行模糊化处理。图1显示了本文中使用的ANFIS结构。对于每个输入参数,有九个输入成员函数。
S4、预测模型性能分析
基于上述参数和ANFIS结构,得到了测试数据集的观测和预测数据。结果表明,用ANFIS方法建立的模型能较好地预测甲烷产量随时间的变化。除了观测值和预测值之间的微小变化外,建立的模型可以清楚地识别出大多数甲烷生产峰值。
使用五个指标,百分比误差(PE)、分数偏差(FB)、均方根误差(RMSE)、标准化均方根误差(NMSE)和一致性指数(IA)来评估数据挖掘算法导出的模型的预测精度。测试数据集的PE为0.10。图2显示了测试数据集的观测和预测数据结果。结果表明,预测值与实测值吻合较好。FB几乎为零,NMSE为0.015。这两种测量结果表明,预测值和观测值之间的差异很小。IA很高,约为0.99。预测值与实测值吻合较好。
S5、验证本发明算法下预测模型准确性
采用神经网络(NN)、支持向量机(SVM)、随机森林树(Random forest tree)和k近邻(k-nearest neighbor)数据挖掘算法来构建甲烷产量的预测模型。为了得到性能最好的神经网络,训练了200个网络,其中最大隐藏单元为30个,选择同一性、逻辑、tanh和指数作为隐神经元和输出神经元的激活函数。对于支持向量机算法,核函数的参数:容量在10到20之间,度数在1到5之间,gamma在0.2到1之间,以获得最佳的参数设置。最大迭代次数设置为1000,以减少测试错误。对于随机森林树,预测因子的数量从2到6,树的数量从100到200。随机数发生器的种子选择在1到5之间。对于k-最近邻算法,选择最近邻的个数作为1到15范围内的奇数。由神经网络建立的模型预测了除94到111周期外的大多数模式和峰值。用支持向量机和k-近邻树建立的模型可以预测模式,但对峰值的预测能力较差。由随机森林树算法建立的模型试图对预测值进行平均,因此对于峰值而言效果不佳。预测模型准确性如表3所示。

表3的结果表明,ANFIS比其他算法建立的模型具有更好的预测精度。具体来说,ANFIS衍生的模型的分数偏差几乎为0,这明显小于其他算法的值。ANFIS构造模型的误差百分比最小。

1.一种基于数据挖掘的污水处理厂甲烷产量预测方法,其特征在于包括如下步骤:
S1、获取污水处理厂的甲烷生产数据并进行预处理,其中生产数据包括污泥流量、总固体、挥发性负荷、有机负荷、滞留时间、污泥滞留时间、厌氧消化器温度和甲烷产量;
S2、对甲烷生产数据进行参数选择,选择出对训练数据集预测精度影响较大的重要参数;
S3、将参数筛选后的数据输入到训练网络当中,训练网络采用自适应神经模糊推理算法ANFIS搭建,训练网络对筛选的数据进行数据训练并构建模糊推理系统,得到预测模型;
S4、将测试数据集数据输入到预测模型,得到甲烷产量的预测结果。

5.根据权利要求1所述的一种基于数据挖掘的污水处理厂甲烷产量预测方法,其特征在于:所述步骤S3具体为将参数筛选后的数据输入到训练网络当中,训练网络采用自适应神经模糊推理算法ANFIS搭建;在建立预测模型的ANFIS算法的第一次运行中,使用九条规则进行训练和测试,利用减法聚类模糊推理系统生成ANFIS结构;用于构建ANFIS结构的参数如下:压缩因子为1.25,接收比为0.5,拒绝比为0.15,影响范围为0.5,最大训练时段设置为200,选取的七个参数用九个标记为MF1到MF9的高斯隶属函数进行模糊化处理,对于每个输入参数,有九个输入成员函数。
