Abstract
본 발명은 웨이블릿 함수 적용 합성곱 신경망을 활용한 자동 질환 분류 방법 에 관한 것이다. 본 발명에 따르면, 자동 질환 분류 방법은 환자의 신체 일부에 부착된 센서로부터 생체 신호를 획득하는 단계, 상기 획득한 생체 신호를 웨이블릿 변환 기반의 제1 학습모델에 입력하여 웨이블릿 변환된 생체 신호를 획득하는 단계, 상기 획득한 웨이블릿 변환된 생체 신호를 제2 학습모델에 입력하여 생체 신호에 포함된 형태적 특징을 분석하여 특징값을 추출하는 단계, 그리고 상기 추출된 특징값을 의사 결정 알고리즘을 기반으로 하는 제3 학습모델에 입력하여 질환의 유형을 분류하는 단계를 포함한다.
Description
본 발명은 웨이블릿 함수 적용 합성곱 신경망을 활용한 자동 질환 분류 방법에 관한 것으로, 더욱 상세하게는 웨이블릿 변환 기반의 합성곱 신경망을 통해 입력된 생체 신호에 압축 또는 팽창된 웨이블릿 함수를 적용하여 웨이블릿 변환된 생체 신호를 추출하고, 웨이블릿 변환된 생체 신호를 합성곱 신경망에 입력하여 질환 유형을 분류하는 자동 질환 분류 방법에 관한 것이다.
부정맥은 심장의 활동전위가 비정상적인 경로 또는 순서로 전도되는 현상으로, 심장의 비정상적인 박동, 불규칙적인 박동(빈맥 또는 서맥), 심박출량의 부족 등으로 이어진다. 이들은 급성 심혈관 질환 또는 만성 합병증으로 이어질 수 있기 때문에, 적절한 관리와 모니터링이 필요하다.
부정맥의 여부 및 유형 분석은 심전도(Electrocardiogram, ECG)의 형태를 분석함으로써 가능하며, 특히 최근에는 딥 뉴럴 네트워크(Deep neural network, DNN)의 발달로 이를 활용한 자동 부정맥 분류 기법이 제시되고 있다.
그 중에서도 합성곱 신경망(Convolutional neural network, CNN)이 주로 활용되는데, 이는 시계열 입력의 패턴 분석에 유리하여 우수한 성능을 보이기 때문이다. 단, 이러한 DNN/CNN 기반 부정맥 분류 기법은 학습 및 결정논리를 해석할 수 없다는 문제(black-box issue)가 있어, 실제 임상에 적용하기에 한계가 있었다.
본 발명의 배경이 되는 기술은 대한민국 등록특허 제10-2163217호 (2020.10.08. 공고)에 개시되어 있다.
본 발명이 이루고자 하는 기술적 과제는 웨이블릿 변환 기반의 합성곱 신경망을 통해 입력된 생체 신호에 압축 또는 팽창된 웨이블릿 함수를 적용하여 웨이블릿 변환된 생체 신호를 추출하고, 웨이블릿 변환된 생체 신호를 합성곱 신경망에 입력하여 질환 유형을 분류하는 자동 질환 분류 방법을 제공하는 것이다.
이러한 기술적 과제를 이루기 위한 본 발명의 실시예에 따르면, 자동 질환 분류 방법은 환자의 신체 일부에 부착된 센서로부터 생체 신호를 획득하는 단계, 상기 획득한 생체 신호를 웨이블릿 변환 기반의 제1 학습모델에 입력하여 웨이블릿 변환된 생체 신호를 획득하는 단계, 상기 획득한 웨이블릿 변환된 생체 신호를 제2 학습모델에 입력하여 생체 신호에 포함된 형태적 특징을 분석하여 특징값을 추출하는 단계, 그리고 상기 추출된 특징값을 의사 결정 알고리즘을 기반으로 하는 제3 학습모델에 입력하여 질환의 유형을 분류하는 단계를 포함한다.
상기 생체 신호는, 심전도(electrocardiogram, ECG) 데이터, 광용적맥파(Photoplethysmogram, PPG) 데이터, 호흡신호, 근전도(Electromyogram, EMG) 데이터, 뇌전도(Electroencypalogram, EEG) 데이터, 위전도(Electrogastrogram, EGG) 데이터 중에서 적어도 하나를 포함할 수 있다.
상기 제1 학습모델은, 입력된 생체 신호에 기 정의된 모웨이블릿(mother wavelet)을 적용하여 압축 또는 팽창시킨 다양한 웨이블릿 함수를 생성하고, 상기 생성된 웨이블릿 함수와 입력된 생체 신호 간의 상호상관연산을 수행하여 웨이블릿 변환된 생체 신호를 출력할 수 있다.
상기 제1 학습모델은, 각각 상이한 스케일을 가지는 웨이블릿 커널로 구성되며, 상기 웨이블릿 커널은 하기의 수학식을 통해 결정될 수 있다.
상기 제1 학습모델은, 하기의 수학식을 이용하여 웨이블릿 변환된 생체 신호를 출력할 수 있다.
여기서, x는 입력 데이터를 나타낸다.
이와 같이 본 발명에 따르면, 웨이블릿(WavelNet) 변환 기반의 질환 분류 모델을 제공함으로써, 종래의 딥 뉴럴 네트워크(Deep neural network, DNN)기반 솔루션의 고질적인 문제인 블랙박스 이슈(black-box issue)를 해소함으로써, 임상에의 적용을 가능케 할 수 있다.
또한, 웨이블릿(WavelNet) 변환 기반의 질환 분류 모델은 별도의 전처리 과정이 필요하지 않고, 입력신호의 주파수 영역 또는 센서의 샘플링 주파수에 구애받지 않으며, 가변 시간-주파수 분해능, 모웨이블릿(mother wavelet) 선택에 대한 유연성을 가지므로 심전도(electrocardiogram, ECG) 뿐만 아니라 광용적맥파(Photoplethysmogram, PPG), 호흡신호, 근전도(Electromyogram, EMG), 뇌전도(Electroencypalogram, EEG), 위전도(Electrogastrogram, EGG) 등의 분석에도 폭 넓게 활용될 수 있다.

아래에서는 첨부한 도면을 참조하여 본 발명이 속하는 기술 분야에서 통상의 지식을 가진 자가 용이하게 실시할 수 있도록 본 발명의 실시 예를 상세히 설명한다. 그러나 본 발명은 여러 가지 상이한 형태로 구현될 수 있으며 여기에서 설명하는 실시예에 한정되지 않는다. 그리고 도면에서 본 발명을 명확하게 설명하기 위해서 설명과 관계없는 부분은 생략하였으며 명세서 전체를 통하여 유사한 부분에 대해서는 유사한 도면 부호를 붙였다.
명세서 전체에서, 어떤 부분이 어떤 구성요소를 "포함"한다고 할 때, 이는 특별히 반대되는 기재가 없는 한 다른 구성요소를 제외하는 것이 아니라 다른 구성요소를 더 포함할 수 있는 것을 의미한다.
그러면 첨부한 도면을 참고로 하여 본 발명의 실시 예에 대하여 본 발명이 속하는 기술 분야에서 통상의 지식을 가진 자가 용이하게 실시할 수 있도록 상세히 설명한다.
이하에서는 도 1를 이용하여 본 발명의 실시예에 따른 자동 질환 분류 장치에 대해 더욱 상세하게 설명한다.
도 1은 본 발명의 실시예에 따른 자동 질환 분류 장치를 설명하기 위한 구성도이다.
도 1에 도시된 바와 같이, 본 발명의 실시예에 따른 자동 질환 분류 장치(100)는 데이터 수신부(110), 웨이블릿 변환부(120), 특징값 추출부(130) 및 질환 분류부(140)를 포함한다.
먼저 데이터 수신부(110)는 생체 신호를 수신한다. 여기서 생체 신호는 심전도(electrocardiogram, ECG) 데이터, 광용적맥파(Photoplethysmogram, PPG) 데이터, 호흡신호, 근전도(Electromyogram, EMG) 데이터, 뇌전도(Electroencypalogram, EEG) 데이터, 위전도(Electrogastrogram, EGG) 데이터 중에서 적어도 하나를 포함한다.
그 다음, 웨이블릿 변환부(120)는 웨이블릿 변환을 기반으로 하는 제1 학습모델을 구축하고, 수신된 생체 신호를 기 구축된 제1 학습모델에 입력하여 웨이블릿 변환이 적용된 생체 신호를 출력한다.
특징값 추출부(130)는 출력된 웨이블릿 변환이 적용된 생체 신호를 제2 학습모델에 입력한다. 그러면, 제2 학습모델은 입력된 생체 신호로부터 특징값을 출력한다.
마지막으로, 질환 분류부(140)는 출력된 특징값을 의사 결정 알고리즘을 기반으로 하는 제3 학습모델에 입력하여 질환의 유형을 분류한다.
이하에서는 도 2 내지 도 5를 이용하여 본 발명의 실시예에 따른 자동 질환 분류 장치(100)를 이용한 자동 질환 분류 방법에 대해 더욱 상세하게 설명한다. 다만, 본 발명의 실시예에 대한 이해도를 높이기 위하여 복수의 생체신호 중에서 심전도 데이터를 생체 신호로 설정하고, 입력되는 심전도 데이터에 따른 부정맥을 분류하는 방법을 일례로 하여 설명하고자 한다. 그러나 본 발명이 반드시 이로 제한되는 것은 아니며 심전도(electrocardiogram, ECG) 데이터, 광용적맥파(Photoplethysmogram, PPG) 데이터, 호흡신호, 근전도(Electromyogram, EMG) 데이터, 뇌전도(Electroencypalogram, EEG) 데이터, 위전도(Electrogastrogram, EGG) 데이터 중에서 적어도 하나를 포함하는 생체신호를 이용하여 다양한 질환을 자동 분류하기 위해서 적용될 수 있다.
도 2는 본 발명의 실시예에 따른 자동 질환 분류 장치를 이용한 자동 질환 분류 방법을 설명하기 위한 순서도이고, 도 3은 도 2에 도시된 자동 질환 분류 방법을 설명하기 위한 도면이다.
이하에서는 도 2 및 도 3에 도시된 바와 같이, 본 발명의 실시예에 따른 자동 질환 분류 장치(100)는 심전도 데이터를 수신한다(S210).
검사자는 복수의 전극을 환자의 팔, 다리, 가슴 등에 부착한 다음, 전류의 크기와 방향을 측정한다. 부연하자면, 검사자는 환자의 신체에 3개의 표준사지유도, 3개의 증폭사지유도 및 6개의 전흉부유도에 대응하여 각각 전극을 부착하고, 12개의 유도에서 측정된 심전도 파형을 획득한다. 심전도 파형은 QRS 방향과 크기를 나타낸다.
다만, 스마트 헬스 기기 시장이 성장함에 따라 표준 심전도 검사 이외에 최소한의 채널을 통해서도 심전도 측정이 가능해졌다. 따라서, 본 발명에서는 2개의 채널이상을 이용하여 측정된 심전도 데이터를 검사자 또는 해당되는 환자로부터 수신한다.
그 다음, 웨이블릿 변환부(120)는 수신된 심전도 데이터를 제1 학습모델에 입력하여 웨이블릿 변환된 심전도 데이터를 획득한다(S220).
도 4은 도 2에 도시된 S220단계를 설명하기 위한 순서도이다.
도 4에 도시된 바와 같이, 웨이블릿 변환부(120)는 데이터셋을 생성한다(S221).
예를 들어 설명하면, 웨이블릿 변환부(120)는 복수의 피험자로부터 획득한 심전도 데이터를 하기의 표 1에 기재된 바와 같이 5개의 등급으로 분류한다.
웨이블릿 변환부(120)는 5개의 등급으로 분류된 복수의 심전도 데이터로부터 각각 트레이닝, 검증 및 테스트 세트로 분류한다.
그 다음, 웨이블릿 변환부(120)는 웨이블릿을 기반으로 하는 제1 학습모델을 구축하고, 생성된 트레이닝 데이터 셋을 이용하여 제1 학습모델을 학습한다(S222).
도 5는 도 4에 도시된 S222단계를 설명하기 위한 예시도이다.
도 5에 도시된 바와 같이, 웨이블릿 변환부(120)는 Daubechies 웨이블릿 패밀리(Db2, Db4, Db6)의 3개 모델과 Symlet 웨이블릿 패밀리(Sym2, Sym4, Sym6)의 3개 모델을 이용하여 다양한 모웨이블릿(mother wavelet)을 채택한 다음, 채택된 모웨이블릿을 기반으로 하는 제1 학습모델을 구축한다.
한편, 본 발명의 실시예에서는 0에서 1의 값으로 제한하며, 커널의 길이로 확장된 모웨이블릿을 채택한다. 이때, 커널의 크기는 하기의 수학식 1을 통해 산출된다.
한편, 모웨이블릿이 확장되면, 즉 스케일 팩터가 1보다 높으면 스케일된 웨이블릿을 트리밍할 수 있다. 반면에 모웨이블릿이 압축되면 스케일된 웨이블릿은 모웨이블릿의 특징을 유지할 수 있다. 따라서, 스케일 팩터는 모웨이블릿을 압축을 위해 0과 1의 값으로 제한된다.
커널의 크기가 결정되면, 웨이블릿 변환부(120)는 제1 학습모델로 하여금 입력값과 커널 사이의 교차 상관 관계를 산출하도록 한다.
즉, 웨이블릿 변환을 기반으로 하는 제1 학습모델은 하기의 수학식 2를 이용하여 웨이블릿 변환된 심전도 데이터를 출력하도록 생성된 트레이닝 데이터 셋을 이용하여 학습된다.
여기서, x는 입력 데이터를 나타낸다.
S222단계가 완료된 상태에서 웨이블릿 변환부(120)는 S210단계에서 수신된 심전도 데이터를 제1 학습모델에 입력하여 웨이블릿 변환된 심전도 데이터를 획득한다(S223).
웨이블릿 변환부(120)는 수신된 심전도 데이터를 제1 학습모델에 입력한다. 그러면, 제1 학습모델은 입력된 생체 신호에 기 정의된 모웨이블릿을 적용하여 압축 또는 팽창시킨 다양한 웨이블릿 함수를 생성하고, 생성된 웨이블릿 함수와 입력된 생체 신호 간의 상호상관연산을 수행하여 웨이블릿 변환된 심전도 데이터를 출력한다.
그 다음, 특징값 추출부(130)는 웨이블릿 변환된 심전도 데이터로부터 특징값을 추출한다(S230).
특징값 추출부(130)는 웨이블릿 변환된 심전도 데이터를 추가 분석하기 위하여 제2 학습모델을 구축하고, 구축된 제2 학습모델에 웨이블릿 변환된 심전도 데이터를 입력하여 웨이블릿 변환된 심전도 데이터로부터 특징값을 추출한다.
부연하자면, 심전도 데이터에서 파형은 크게 P파, QRS군 및 T파를 포함하며, 간격은 PR interval과 QT interval로 구성된다. 부정맥은 맥박이 규칙적이지 않거나 정삼범위 내의 빈도를 벗어난 상태를 지칭하며, 이는 P파, QRS군 및 T파가 불규칙하게 출력되거나, PR 또는 QT의 간격이 짧거나 길어지는 형태로 출력될 수 있다.
따라서, 제2 학습모델은 웨이블릿 변환된 심전도 데이터와 표준 심전도 데이터를 비교하여 특징값을 추출한다.
마지막으로 질환 분류부(140)는 추출된 특징값을 이용하여 부정맥의 종류를 분류한다(S240).
질환 분류부(140)는 의사 결정 알고리즘을 기반으로 하는 제3 학습모델을 구축하고, 구축된 제3 학습모델에 특징값을 입력한다. 그러면, 제3 학습모델은 입력된 특징값에 따라 부정맥 발생 여부 및 부정맥 유형을 분류하여 출력한다.
도 6은 본 발명의 실시예에 적용된 웨이블릿 기반의 부정맥 분류 모델과 종래의 CNN 기반의 부정맥 분류 모델을 성능 비교 결과를 나타내는 도면이다.
도 6은 Daubechies-2,4,6, Symlet-2,4,6으로 개발한 총 여섯 개의 서로 다른 웨이블릿(WavelNet) 기반 부정맥 분류 기법과 기존 CNN 기반의 부정맥 분류 기법의 성능을 비교한 것이다. 대부분의 웨이블릿(WavelNet) 기반 부정맥 분류 기법이 기존 CNN 기반의 부정맥 분류 기법보다 우수한 성능을 보였으며, 그 중에서도 Symlet-4 mother wavelet을 활용한 기법이 가장 우수한 성능을 보였다. 구체적으로는 Non-ectopic beat, supraventricular ectopic beat, ventricular ectopic beat 분류에 대한 WavelNet 기반 모델(Symlet-4 채택)의 민감도는 각각 91.4%, 49.3%, 91.4%로, CNN 기반 모델(각각 87.3%, 14.9%, 83.3%) 에 비해 성능이 크게 향상되었으며, 양성률, 위양성률도 마찬가지로 더 향상된 성능을 보였다. 전체 정확도 또한 83.7% (CNN 모델)에서 89.1% (WavelNet 모델)로 우수한 성능을 보였다.
이와 같이 본 발명에 따른 자동 질환 분류 방법은 웨이블릿(WavelNet) 변환 기반의 질환 분류 모델을 제공함으로써, 종래의 CNN 기반 솔루션에 비해 우수한 성능을 보일 수 있다.
뿐만 아니라, 학습된 매개 변수인 스케일 팩터 AI를 관찰함으로써, 웨이블릿 변환 기반의 질환 분류 모델(WavelNet)이 정확한 질환 분류를 위해 어떤 주파수 영역을 주로 분석하도록 학습되었는지 해석할 수 있다. 즉, 종래의 딥 뉴럴 네트워크(Deep neural network, DNN)기반 솔루션의 고질적인 문제인 블랙박스 이슈(black-box issue)를 해소함으로써, 임상에의 적용을 가능케 할 수 있다.
또한, 본 발명에 따른 자동 질환 분류 방법은 웨이블릿(WavelNet) 변환 기반의 질환 분류 모델은 별도의 전처리 과정이 필요하지 않고, 입력신호의 주파수 영역 또는 센서의 샘플링 주파수에 구애받지 않으며, 가변 시간-주파수 분해능, 모웨이블릿(mother wavelet) 선택에 대한 유연성을 가지므로 심전도(electrocardiogram, ECG) 뿐만 아니라 광용적맥파(Photoplethysmogram, PPG), 호흡신호, 근전도(Electromyogram, EMG), 뇌전도(Electroencypalogram, EEG), 위전도(Electrogastrogram, EGG) 등의 분석에도 폭 넓게 활용될 수 있다.
본 발명은 도면에 도시된 실시예를 참고로 설명되었으나 이는 예시적인 것에 불과하며, 본 기술 분야의 통상의 지식을 가진 자라면 이로부터 다양한 변형 및 균등한 다른 실시예가 가능하다는 점을 이해할 것이다. 따라서, 본 발명의 진정한 기술적 보호 범위는 첨부된 특허청구범위의 기술적 사상에 의하여 정해져야 할 것이다.

- 환자의 신체 일부에 부착된 센서로부터 생체 신호를 획득하는 단계,상기 획득한 생체 신호를 웨이블릿 변환 기반의 제1 학습모델에 입력하여 웨이블릿 변환된 생체 신호를 획득하는 단계,상기 획득한 웨이블릿 변환된 생체 신호를 제2 학습모델에 입력하여 생체 신호에 포함된 형태적 특징을 분석하여 특징값을 추출하는 단계, 그리고상기 추출된 특징값을 의사 결정 알고리즘을 기반으로 하는 제3 학습모델에 입력하여 질환의 유형을 분류하는 단계를 포함하는 자동 질환 분류 방법.
