Description

딥러닝을 이용한 해양 부유식 구조물의 계류선 손상 탐지 방법{Damage detection method for mooring lines of submersible structures based on deep learning}Damage detection method for mooring lines of submersible structures based on deep learning}

The present invention relates to a mooring line damage detection method of deep floating marine structures using deep learning, and more specifically, by using deep learning (environmental load) and the behavior of the marine floating structure platform corresponding to digging and wind The present invention relates to a method for detecting mooring line damage of a floating structure using deep learning, which enables to estimate the mooring line damage, thereby accurately detecting the damage of the mooring line at a lower cost.

In general, the floating structure is a structure floating on the surface for the purpose of exploration or drilling of resources, the demand is gradually increasing for the purpose of developing a relatively rich marine resources compared to the land resources are depleted.

Such floating structures are supported by mooring vessels. Damage to mooring vessels can cause structural problems of the floating structure, so it is important to detect and maintain the mooring vessels.

The mooring of the mooring line is mainly caused by corrosion or abrasion. As a method for evaluating the damage caused by the mooring of the mooring line, non-destructive inspection using equipment and monitoring technique using various sensors are used.

First, as the non-destructive inspection, photographing or video recording, dye penetration method, underwater sound wave method, etc. are used. Since the damage of mooring lines is directly detected, it is more accurate than the monitoring method using a sensor, Due to the peculiarity, there is a disadvantage in that the error is large depending on the survey equipment.

In addition, the monitoring method is a method for monitoring and estimating the behavior of mooring lines using data measured through sensors such as inclinometers, angometers, and accelerometers provided in the mooring lines, and detecting damage to the mooring lines through the estimated behavior. It is based on the method, but it has the advantage that damage estimation can be done in real time, but it has the disadvantage that the error of the sensor installed on the sea floor is large as in the non-destructive inspection.

In addition, the monitoring technique has to install a sensor such as an accelerometer on the mooring ship in order to monitor the behavior of the mooring ship, it takes a lot of installation cost and maintenance cost, and difficult to maintain and manage due to the peculiarity of the seabed environment There is also.

That is, the non-destructive inspection or monitoring technique has a problem in that accuracy is low because the measuring instruments are largely influenced by the environment and thus measurement errors due to environmental factors are large.

Therefore, there is a need for a new detection method that can improve the accuracy of mooring line damage detection by minimizing the influence of the environment.

The data pretreatment step may include: behavior data obtained in the simulation step; a first pretreatment step of representing an environmental load of the structure installation area as an average value and a standard deviation value during a period greater than the natural period of the wave; and the first pretreatment. According to the present invention, deep learning has an excellent effect of accurately estimating the damage of mooring lines only by the environmental loads corresponding to the digging and wind and the behavior of the floating structure platform.

In addition, according to the present invention, by using the equipment already installed in the floating structure, or install the equipment or measuring sensor on the platform of the floating structure rather than the mooring line of the seabed, it can not only significantly reduce the installation and maintenance costs compared to the conventional In addition, since the damage of the mooring line is estimated using data obtained from the platform rather than the data obtained from the mooring line, the accuracy of the estimation may be further improved by using data having a smaller error than the conventional art.

The present invention is to use the deep learning to estimate the damage of mooring vessels only by the environmental load corresponding to the wave and wind and the behavior of the marine floating structure platform 12 to accurately detect the damage of mooring vessels at a lower cost The present invention relates to a mooring line damage detection method of a deep floating structure using deep learning, and deep learning (deep learning) used in the present invention refers to an artificial intelligence learning method in which a computer continuously learns and learns as a human being. As one of artificial neural network methodology, it is mainly used in the field requiring high predictive power.

That is, the present invention is based on such deep learning platform 12 through the impact of environmental load, that is, the wave and wind of the area where the platform 12 is installed, and the movement of the platform 12, that is, six degrees of freedom. It relates to a method to be able to estimate the damage of the mooring line (14) supporting the.

As described above, the present invention includes a modeling step (S10), a simulation step (S20), a data preprocessing step (S30), a deep learning step (S40), and a damage estimation step (S50). Is done.

In more detail, the modeling step S10 relates to modeling the marine floating structure 10 including the mooring line 14 and the platform 12 using a computer. Up to (12) was modeled offshore floating structure 10 is installed with a vertical mooring line 14 connected to a plurality of mooring line 14 vertically.

Next, the simulation step (S20) relates to the step of obtaining damage data of the structure 10 through a simulation by simulating damage to the mooring line 14 of the modeled marine floating structure 10, in the present invention By adopting the concept of Cyber Physical System (CPS) that makes the environment the same as the real environment, we can simulate the environment most similar to reality.

That is, the data in the actual structure 10 is required for learning in the deep learning learning step (S40) to be described later, but artificially damaging the mooring line 14 of the actual marine floating structure 10 is a floating structure (10) It is not desirable to impair the safety of the (10) as well as practically impossible to borrow the concept of the virtual physical system to the floating structure (10) modeled in the modeling step (S10), the actual environmental load, that is, wind and digging The simulation is applied to simulate the environment most similar to reality.

At this time, in order to obtain more accurate behavior data of the platform 12 and to estimate as much damage as possible through deep learning, the mooring line 14 as shown in FIGS. It is desirable to simulate by simulating damage of various sizes at various locations in

In more detail, in the simulation step S20, it is assumed that the marine floating structure 10 modeled in the modeling step S10 is installed at a point having a depth of about 914.36m (3,000ft), and the floating structure 10 Among the various environmental loads acting on), the biggest influence on the behavior of the structure is digging and wind, so the analysis of the behavior of the floating structure 10 is performed by intensively considering two environmental loads.

In addition, since the wave height and the wind changes randomly with time, in order to implement this in the analysis, the wave history and the wind history were generated by using the wave height and the spectrum of the wind. In the case of the wave, JONSWAP (Joint North Sea) Wave Project) spectrum was used, and for the wind, the API spectrum (API2INT-MET, 2007) was used.

In addition, the simulation using the environmental load, that is, the wave height and the spectrum of the wind and the behavior analysis program of the floating structure 10 used CHARM3D.

In order to implement the behavior of the platform 12 under various conditions, simulation was performed for a total of 25 environmental loads by combining environmental loads, that is, wave height and wind, as shown in Table 1 below.

At this time, the behavior data that can be obtained through the simulation under the environmental load conditions described above include six degrees of freedom (horizontal, vertical, depth, pitch, yaw and roll) behavior data of the platform 12 and the mooring line 14. Behavior data, that is, acceleration, angular velocity, and tension data at a plurality of nodes set in the mooring line 14, and the mooring line 14 is damaged when deep learning learning is performed using all such behavior data. It was confirmed that the accuracy of predicting the accuracy of the test data, that is, the accuracy of converting the number of data accurately estimated damage to the probability value, converged to 100%.

However, using the behavior data of the mooring line 14 is the same as meaning that the measuring instrument should be installed at all nodes set in the mooring line 14, so it is practically impossible to obtain the behavior data of the mooring line 14.

Therefore, in the present invention, the deep learning learning is carried out using only six degrees of freedom behavior data of the platform 12, which is relatively easy to obtain, so that the present invention can be realistically applied, but the behavior data of the platform 12 only predicts the mooring line 14 damage. The accuracy reached 96.9%.

Next, the data preprocessing step (S30) is the behavior data obtained in the above-described simulation step (S20), that is, six degrees of freedom behavior data of the platform 12, and the environment of the structure 10 installation area used in the simulation process The present invention relates to a step of preprocessing load data to be used for deep learning, and serves to reduce errors in deep learning by reflecting time series characteristics of the data.

That is, the behavior data of the platform 12 obtained through the simulation is composed of time series data, and because the behavior of the platform 12 is unstable, the data is severely changed for each time zone, so deep learning learning cannot be performed properly. In order to minimize the impact of data changes, the data used for deep learning learning is preprocessed.

In more detail, the data preprocessing step S30 includes a first preprocessing step S32 and a second preprocessing step S34. First, the first preprocessing step S32 is performed in a simulation step S20. After the six degrees of freedom behavior data of the platform 12 and the environmental load applied in the simulation step S20, that is, wind and wave height, are divided into specific periods, the data for each of the divided periods are represented by the mean value and the standard deviation value. It's about the steps.

In this case, in order to confirm the behavior of the platform 12, the period determined in the first preprocessing step S32 should be determined to be longer than the period of the left and right movements of the platform 12. Since the dominant element of the left and right movements of 12) is a wave, the characteristics of the behavior of the platform 12 can be obtained by using a period larger than about 15 seconds, which is an intrinsic period of the wave movement.

When the period is determined as described above, deep learning to be described later by reducing the amount of change of the data by obtaining the average value and the standard deviation value during the period for each data, that is, the six degrees of freedom behavior data of the platform 12 and the data of the wind and the wave height It is possible to reduce the influence of the data change in the learning step (S40).

3 shows an example of the first preprocessing step S32 as described above, and illustrates a case where the period for obtaining the average value and the standard deviation value is set to 250 seconds.

If the during the first 250 seconds as the time T 1, the average value and standard deviation value at each point in time T 1

, s 1 .

As shown in FIG. 3, even after the first preprocessing of the data is completed, the absolute value difference of the data values at each time point appears to be large, and this phenomenon may be an obstacle to deep learning, which will be described later. Will work.

Therefore, a second preprocessing step S34 of preprocessing the data pre-processed in the first preprocessing step S32 is performed once more, and the second preprocessing step S34 is obtained in the first preprocessing step S32. This step is to normalize the mean value and the standard deviation value.

Normalization performed in the second preprocessing step (S34) is performed by the following Equation (1) and Equation (2),

As described above, when the first and second preprocessing steps S32 and S34 for the data obtained through the simulation step S20 are completed, the absolute value change of the data for a predetermined period is significantly reduced, so that the deep learning learning step will be described later. In operation S40, the influence of the change of data may be minimized to improve the accuracy.

Next, the deep learning learning step (S40) relates to a step of deep learning learning by inputting the data pre-processed in the data preprocessing step (S30) to a computer, the total number of data used for deep learning learning in the present invention Is 13,500 pieces, and the data are composed of training data (10,800 pieces) and test data (2,700 pieces) at a ratio of 8: 2.

Each of the data consists of 16 variables and a label of damaged mooring line 14, with the variables used digging, wind size, each mean and standard deviation of the six degrees of freedom of platform 12, and the second preprocessed normalized data. The damage of the mooring line 14 may be divided into global damage in which damage occurs in the range of about 300m of the length of the entire mooring line 14, and local damage in which damage occurs in the range of about 0.6m. have.

In order to prevent the accuracy of the deep learning model and to prevent overfitting of the training data, 10% of the training data, that is, 1,080 pieces, were composed of validation data. Accordingly, the training data used for the actual deep learning training was performed. The number of is 9,720.

FIG. 4 illustrates a deep learning architecture in the deep learning learning process (S40) as described above, and is composed of a total of six layers.

The size of the batch is 200 as a hyperparameter used for deep learning, and the ReLU (Rectified Linear Unit) function is used as an activation function, and the Softmax function is used as a classifier.

Next, the damage estimation step (S50) relates to the step of verifying the deep learning model learned in the deep learning learning step (S40) and estimating the damage of the mooring line 14 through the verified deep learning model. For the verification of the deep learning model, the global and local damage of the mooring line 14 was simulated using CHARM3D, a computer simulation program.

FIG. 5 shows the results of verifying the learned deep learning model by simulating global damage on the mooring line 14. The deep learning learning was stopped when the validation accuracy was the highest.

First, randomly select one of the upper, middle, and lower positions from the mooring line 14 of 1,000 m in total length, and give 50% damage (50% cross-sectional damage of 300m length) to the 300m length of the corresponding position. In one case, as shown in (a) of FIG. 5, it was confirmed that convergence occurs in about 400,000 iterations, that is, about 8,000 epochs.

Similarly, one of the upper, middle, and lower positions is randomly selected from the mooring line 14 having a total length of 1,000 m to give 20% damage (20% cross-sectional damage of 300m length) to the 300m length of the corresponding position. In case of simulation, as shown in (b) of FIG. 5, it was confirmed that convergence occurred in about 1,000,000 iterations, that is, about 20,000 epochs.

As a result of the above verification, assuming that there is no measurement error for the crest, wind, and six degrees of freedom behavior data of the platform 12, the accuracy of the deep learning model for global damage of the mooring line 14 after the deep learning is completed is It was 98.04% for 50% of the damage and 99.22% for 20% of the damage.

Meanwhile, FIG. 6 illustrates a result of verifying a trained deep learning model by simulating a case in which local damage occurs in the mooring line 14, and randomly selecting an arbitrary place in a mooring line 14 of 1,000 m. It was simulated by giving 20% damage (20% cross-sectional damage of 0.6m length) to 0.6m length of the location.

As in the case of global damage, deep learning learning was stopped when the validation accuracy was the highest, and as a result, it was confirmed that it converged at about 2,000,000 iterations, or about 40,000 epochs.

Similarly, assuming there are no instrumentation errors for wave, wind, and six degrees of freedom behavior data of platform 12, the deep learning model's accuracy for local damage of mooring line 14 after deep learning is completed is 20% of damage. For 96.93%.

As a result of the above verification, the prediction accuracy of the mooring line 14 damage by the deep learning model learned by the present invention is 98% or more for the mooring line 14 global damage and 96% or more for the mooring line 14 local damage. It can be seen that the damage to the mooring line 14 can be accurately estimated through the deep learning model trained only by the environmental load, ie wind and wave, and the behavior data of the platform 12.

On the other hand, when the above-described measurement error, that is, the measurement error for the 6 degree of freedom behavior data of the wave height, the wind, and the platform 12 is 10%, the prediction accuracy by the deep learning model learned by the present invention is all over the mooring line 14. 83.93% and 76.74% for damage and local damage, respectively, were lower than assuming no measurement error, but considering the measurement error of the general floating structure 10 within 5%, considering the measurement error However, it can be seen that the damage prediction accuracy of the mooring line 14 by the deep learning model learned by the present invention is reliable.

Therefore, according to the mooring line damage detection method of the deep floating structure using deep learning according to the present invention as described above, the environmental load corresponding to the digging and wind using the deep learning and the behavior of the floating structure platform 12 Not only to accurately estimate the damage to the mooring vessels 14, but also to use the equipment already installed in the floating structure 10, or to the platform 12 of the floating structure 10 rather than the mooring vessel 14 of the seabed. By installing equipment or measuring sensors in the system, installation and maintenance costs can be significantly reduced compared to the prior art, and damage to the mooring vessel 14 can be avoided by using data obtained from the platform 12 rather than data obtained from the mooring vessel 14. Since the estimation has various advantages, the accuracy of the estimation can be improved by using data having a smaller error than the conventional method.

Although the above embodiments have been described with respect to the most preferred examples of the present invention, it is not limited to the above embodiments, and it will be apparent to those skilled in the art that various modifications can be made without departing from the technical spirit of the present invention.

The present invention relates to a mooring line damage detection method of deep floating structures using deep learning, and more specifically, to the damage of mooring lines only by the environmental load corresponding to the wave and wind and the behavior of the offshore floating structure platform using deep learning.
